Recent Advances in Speech Language Models: A Survey
Paper · 2025 · Wenqian Cui, Dianzhi Yu, Xiaoqi Jiao et al.
Summary
Voice assistants are often built as a cascade of three systems: speech recognition, a text LLM, and speech synthesis (the "ASR + LLM + TTS" pipeline). The authors identify three weaknesses in this design. It discards paralinguistic cues such as pitch and timbre, the chained modules add noticeable delay, and early mistakes carry through to later stages.
This survey reviews Speech Language Models (SpeechLMs), which the authors define as autoregressive foundation models that both take in and produce speech, optionally mixed with text. They split such systems into three parts:
- a speech tokenizer,
- a transformer-based language model,
- a vocoder that turns predicted tokens back into audio.
Tokenizers are grouped by goal: semantic content, acoustic reconstruction, or a mix of both. The paper also covers training recipes, sorts evaluation into automatic and human methods, and offers a model taxonomy in its appendix. It ends with open problems: comparing component choices, fully end-to-end training, safety, and low-resource languages. It is a structured entry point to a fast-moving field.
Key points
- Tokenizer families:
- Semantic: wav2vec 2.0, w2v-BERT, HuBERT, Google USM, WavLM.
- Acoustic: neural audio codecs using VQ or RVQ.
- Mixed: SpeechTokenizer distills HuBERT into its first RVQ layer, and Mimi distills WavLM into a separate VQ layer.
- To handle text and speech jointly, the text LLM's vocabulary is extended by appending a speech-token embedding matrix to the text embedding matrix. Continuous tokens are instead fed directly as embeddings.
- Benchmarks such as MMAU, AirBench and AudioBench mostly expect text answers. VoxEval is presented as suited to judging spoken output.
- Human evaluation relies on MOS (1–5 scale) and its variants MMOS, PMOS and SMOS, which target naturalness, prosody and timbre similarity.
- Speech-based modeling is highlighted as promising for low-resource languages and dialects, since these often have more audio than text. A paper list is maintained at GitHub (Awesome-SpeechLM-Survey).
