Paralinguistics-Aware Speech-Empowered Large Language Models for Natural Conversation
Paper · 2024 · Heeseung Kim, Soonshin Seo, Kyeongseok Jeong et al.
Summary
Voice assistants built on LLMs usually chain separate ASR and TTS modules. This pipeline loses paralinguistic cues such as emotion and prosody, and recognition errors carry through to later stages. Kim et al. (Seoul National University and NAVER) propose USDM (Unified Spoken Dialog Model), an end-to-end speech-text LLM that hears spoken input and answers in speech whose prosody fits the context.
The authors show that SeamlessM4T acoustic units with a large vocabulary carry prosody as well as content, and they build a matching prosody-infusing encoder and speech decoder around them. Mistral-7B is then pretrained on English speech-text pairs using many self-supervised objectives that cover both continuation and correspondence relations between the two modalities. Finally, the model is fine-tuned on dialog with a multi-step template: it transcribes the input, writes a text reply, and then produces speech tokens.
On DailyTalk, both automatic metrics and human raters favour USDM over earlier and cascaded baselines in content, prosody and naturalness. This makes it a practical foundation for speech-enabled chat LLMs.
Key points
- Speech tokens: units come from the SeamlessM4T extractor, which runs XLS-R features at 50Hz from 16kHz audio and clusters them into k = 10,000 units. Emotion classification on CREMA-D (six classes) and pitch-contour reconstruction both indicate that these units retain prosody.
- Backbone and data: the backbone LLM is Mistral-7B, whose pretraining draws on an English speech-text corpus amounting to tens of thousands of hours. Fine-tuning and evaluation use the DailyTalk dataset.
- Comparison with the cascaded baseline: the baseline uses whisper-large-v3 for ASR and achieves lower ASR WER. USDM nevertheless produces semantically better responses (METEOR 13.1, ROUGE-L 15.7). Attention maps show that USDM's replies draw on both the raw speech and its transcript.
- Ablations: dropping correspondence-relation pretraining sharply raises STT and TTS WER. Generating speech directly from speech, without intermediate text, weakens responses. Feeding ground-truth transcripts raises scores to 13.6 METEOR and 16.2 ROUGE-L.
- Availability and limitations: the paper appeared at NeurIPS 2024, with code and checkpoints at github.com/naver-ai/usdm. The work is English-only so far, and the authors plan to extend it to lower-resource languages.
