High-Fidelity Audio Compression with Improved RVQGAN
Paper · 2023 · Rithesh Kumar, Prem Seetharaman, Alejandro Luebs et al.
Summary
Audio language models such as AudioLM, MusicLM and VALL-E need a neural codec that turns waveforms into compact discrete tokens. Existing codecs like SoundStream and EnCodec often leave audible artifacts, handle high frequencies poorly, and tend to suit only certain audio types. The authors from Descript propose Improved RVQGAN, a single universal codec for speech, music and environmental sounds. It is a convolutional encoder-decoder with residual vector quantization (RVQ), trained with adversarial and reconstruction objectives. Its main changes are:
- Snake periodic activations.
- Codebook lookups in a low-dimensional projected space, which counters codebook collapse.
- A fix for the quality loss caused by quantizer dropout.
- A multi-band multi-scale STFT discriminator and a multi-scale mel loss.
- Balanced sampling between full-band and band-limited training data.
The model compresses 44.1 kHz audio to 8 kbps, roughly a 90x reduction. It beats EnCodec, Lyra and Opus on objective metrics and on MUSHRA listening tests at every bitrate tested, even against EnCodec running at 3x the bitrate. Code and weights are open-sourced, making it a practical drop-in tokenizer for generative audio work.
Key points
- Configuration: 44.1 kHz input, encoder stride 512, 86 Hz code frame rate, and 9 codebooks of 10 bits each. This gives about 91x compression, compared with 16x for EnCodec (24 kHz, 32 codebooks) and 64x for SoundStream.
- Objective results at 8 kbps: mel distance 0.93, ViSQOL 4.18 and SI-SDR 10.75 dB, with 22.05 kHz bandwidth. EnCodec at 24 kbps reaches only 1.61, 3.16 and 9.59 dB, with 12 kHz bandwidth.
- Equal-configuration comparison: retrained with EnCodec's exact settings (24 kHz, 24 kbps, 32 codebooks), the model still outperforms EnCodec in both metrics and listening tests.
- Effect of balanced data sampling: without it, outputs stopped at about 18 kHz, because most training audio was MPEG-style band-limited. Sampling high-quality full-band sets such as DAPS as often as sets like Common Voice fixed this.
- Limitations: the codec works best on speech and is weaker on environmental sounds and some instruments, such as glockenspiel and synthesizers. Its MUSHRA scores remain below the reference. Code is released as descript-audio-codec on GitHub.
