SpeechT5: Unified-Modal Encoder-Decoder Pre-Training for Spoken Language Processing
Paper · 2022 · Junyi Ao, Rui Wang, Long Zhou et al.
Summary
Most self-supervised speech models learn only from untranscribed audio and pre-train only an encoder. As a result, they ignore text data and leave decoders for generation tasks untrained. SpeechT5, inspired by T5, treats every spoken language task as turning speech or text into speech or text. A single Transformer encoder-decoder sits between six modality-specific pre-nets and post-nets. These map raw waveforms, characters and log Mel-filterbank features into and out of a common hidden space. Pre-training uses unlabeled audio, through HuBERT-style masked prediction plus spectrogram reconstruction, and unlabeled text, through BART-style span infilling. To link the two modalities, encoder outputs are quantized against a shared codebook and randomly mixed with the continuous states before they reach the decoder's cross-attention. After fine-tuning, one backbone covers ASR, TTS, ST, VC, SE and SID. It outperforms wav2vec 2.0 and HuBERT (Base) on ASR, the voice Transformer network on VC, and SpeechNet and SUPERB models on SID. The work shows that a single jointly pre-trained model can serve both recognition and generation in speech.
Key points
- The architecture has one shared Transformer encoder-decoder with relative position embeddings and six speech/text pre/post-nets.
- The speech-encoder pre-net is the wav2vec 2.0 convolutional extractor.
- x-vector speaker embeddings support multi-speaker TTS and VC.
- A vocoder (Kong et al., 2020) produces the final waveform.
- Speech masking selects 8% of timesteps as span starts and masks spans of 10 steps. The targets come from k-means with 500 clusters on layer 6 of a first-iteration HuBERT Base model.
- Text pre-training masks 30% of the text in spans whose lengths follow a Poisson distribution (λ = 3.5). Each span is replaced by a single mask token.
- SpeechT5 reaches 96.49% accuracy on SID, a state-of-the-art result. In the ablation study, removing speech pre-training prevents the ASR model from converging, and dropping joint pre-training hurts ASR.
- Code and models are released at github.com/microsoft/SpeechT5.
