Scaling Speech-Text Pre-training with Synthetic Interleaved Data
Paper · 2024 · Aohan Zeng, Zhengxiao Du, Mingdao Liu et al.
Summary
Speech language models (SpeechLMs) have far less training material than text LLMs. FineWeb offers about 15T text tokens, while a large unsupervised speech set like VoxPopuli gives only around 36B tokens. Parallel speech-text data is also limited. The authors work around this by creating speech-text interleaved training data from ordinary text. They pick spans in a text corpus and convert them directly into discrete speech tokens with a text-to-token model trained on TTS data, so no audio waveform is ever generated.
Speech is tokenized by a supervised tokenizer: a Whisper-based ASR encoder fine-tuned with average pooling and a vector-quantized bottleneck, adapted for streaming. A CosyVoice-style flow-matching decoder turns tokens back into audio. Starting from a pre-trained LM, they train on 1T tokens and then fine-tune on speech dialogues to build an end-to-end spoken chatbot. Spoken QA accuracy roughly doubles over the previous best system. This shows that text corpora can substitute for scarce speech data when scaling SpeechLMs.
Key points
- Pre-training covers 1 trillion tokens, of which 600B are synthetic interleaved speech-text tokens built from text corpora such as FineWeb.
- Spoken question answering improves from 13% (Moshi, previous SOTA) to 31%. Performance keeps rising as more synthetic interleaved data is added.
- The tokenizer uses a single codebook at 12.5Hz, chosen after testing rates from 6.25Hz to 50Hz. On LibriSpeech at 12.5Hz it reaches WER 8.43 at 175 bps, with VisQOL 2.52 and MOSNet 3.39. At 50Hz WER is 6.24, and at 6.25Hz it is 14.41.
- Streaming support comes from causal convolution and block causal attention over 2-second segments. The authors report that this matches the ASR quality of bidirectional attention.
- The speech decoder follows CosyVoice: a token encoder, conditional flow matching producing Mel spectrograms, and a HiFi-GAN vocoder. The fine-tuned chatbot works purely in speech, and the authors report quality competitive with existing baselines.
