CosyVoice 2: Scalable Streaming Speech Synthesis with Large Language Models

Paper · 2024 · Zhihao Du, Yuxuan Wang, Qian Chen et al.

Summary

CosyVoice 2, from Alibaba Group, addresses a practical gap in zero-shot text-to-speech. Most strong systems, especially diffusion-based and hybrid LM-plus-diffusion designs, work only offline: they wait for the full text before producing any audio. That makes them too slow for voice chat with multimodal LLMs. The authors keep the predecessor's split between semantic and acoustic modeling but rework each stage. The speech tokenizer swaps vector quantization for finite scalar quantization inside the SenseVoice-Large ASR encoder, so the whole codebook gets used. The text-speech LM drops the text encoder and speaker embedding and starts directly from the textual LLM Qwen2.5-0.5B. Streaming and offline modes differ only in how text and speech tokens are ordered in the sequence. A chunk-aware causal flow matching model then converts tokens into Mel spectra in either mode. After training on large multilingual data, the system reaches roughly human-level naturalness, and its streaming output is nearly as good as offline synthesis. One deployable model therefore serves both interactive and batch scenarios. Code and checkpoints are public.

Key points

  • Tokenizer and input: FSQ projects encoder states into a low-rank D-dimensional space and rounds each dimension to the range [−K, K]. Tokens are produced at 25 Hz, i.e. 25 per second. Raw text enters through a BPE tokenizer without any g2p frontend. BPE tokens that cover several Chinese characters are split into single characters.
  • Unified LM: In non-streaming mode, the full text is followed by a turn-of-speech token and then the speech tokens. In streaming mode, text and speech tokens are interleaved at a fixed N:M ratio, and a filling token tells the system to feed in the next text chunk.
  • Instruction control in one model: Emotion, accent, role style and fine-grained controls are merged with zero-shot cloning. On an in-house Chinese set, CosyVoice 2 scores CER 1.52, SS 0.804, NMOS 3.94 and MOS-I 4.06. CosyVoice-Instruct scores 1.72, 0.797, 3.94 and 3.09 on the same measures.
  • Speaker fine-tuning: About 400 recordings of a target speaker are enough for good quality. For a difficult speaker (Spk E), the authors apply DPO on 10k synthesized pairs plus a differentiable ASR reward. Combining both cuts in-house WER from 7.15 (SFT) to 6.64 and SEED test-hard WER from 7.90 to 6.66. The differentiable ASR reward generalizes better than DPO on out-of-domain input.
  • Limitations and release: The model supports few languages and struggles with languages that share character sets. Timbre cannot be controlled through text instructions, and singing is weak. Code is available at github.com/FunAudioLLM/CosyVoice.
