PaLM: Scaling Language Modeling with Pathways
Summary
The authors investigate how the size of a language model affects its ability to solve tasks from a few examples (few-shot), without task-specific fine-tuning. They trained PaLM, a dense decoder-only Transformer model with 540 billion parameters. The training corpus contained 780 billion tokens of high-quality, diverse text. Training was distributed across 6144 TPU v4 chips in two pods using the new Pathways system. Pipeline parallelism was not used, and hardware utilization efficiency reached a record for models of this size. PaLM achieved state-of-the-art few-shot results on hundreds of benchmarks spanning language understanding and generation, code, translation, and multilingual tasks. Combined with chain-of-thought prompting, the model matched or outperformed fine-tuned systems on multi-step arithmetic and logical reasoning. The value of the work lies in showing that the benefits of scaling are not yet exhausted and that some capabilities emerge only in very large models. The authors also separately analyze bias, toxicity, and memorization of training data.
Key points
- Three model sizes were trained identically: 8B, 62B, and 540B. Quality usually improves roughly log-linearly, but on some BIG-bench tasks it jumps sharply only at 540B.
- Training efficiency: 46.2% model FLOPs utilization and 57.8% hardware FLOPs utilization on 6144 TPU v4 chips. Previous large models were trained on at most 4096 TPU v3 chips.
- Across the 29 most widely used English NLP benchmarks, PaLM surpassed the previous best few-shot results on 28. It was compared with GPT-3, GLaM, Gopher, Chinchilla, Megatron–Turing NLG, and LaMDA.
- On BIG-bench (more than 150 challenging tasks), PaLM 540B in the 5-shot setting exceeds the average human performance.
- The model can produce explicit chains of reasoning: it explains jokes and draws logical inferences. The paper also includes an analysis of bias, toxicity, memorization, and test data contamination (dataset contamination).
