MAmmoTH-VL: Eliciting Multimodal Reasoning with Instruction Tuning at Scale

Paper · 2025 · Jiawei Guo, Tianyu Zheng, Yizhi Li et al.

Summary

Open-source multimodal LLMs tend to struggle with complex reasoning. A major reason is that their instruction-tuning data is mostly recycled from academic VQA-style sets such as VQA, AI2D, and ChartQA, which offer short answers and no step-by-step justification. The authors propose a low-cost pipeline built entirely on open-weight models to produce reasoning-rich training data at scale. They first manually screen 153 public multimodal instruction datasets. Datasets with weak answers are then rewritten by open MLLMs/LLMs into harder tasks paired with detailed chain-of-thought responses. Finally, the same MLLM acts as a judge to discard hallucinated or illogical samples. The result is MAmmoTH-VL-Instruct, about 12M instruction-response pairs. Training MAmmoTH-VL-8B, which uses the LLaVA-OneVision architecture, on this data yields state-of-the-art results among open models on reasoning benchmarks and modest gains elsewhere. The work shows that strong multimodal CoT data can be built without human annotation or proprietary models such as GPT-4.

Key points

  • Source screening: 153 sources were sampled (1,000 items each) and sorted into three groups. 58 high-quality sets were kept unchanged, 60 sets with thin answers were rewritten, and 35 shallow sets were dropped. The remaining 118 datasets were organized into 10 categories, including General, OCR, Chart, Code&Math, Multi-Image, and Video.
  • Reported gains: Compared with prior open SoTA models, MAmmoTH-VL-8B improves by +8.1% on MathVerse, +7% on MMMU-Pro, and +13.3% on MuirBench. It gains up to 4% on non-reasoning benchmarks.
  • MLLM-as-judge filtering: Self-filtering notably improves results, especially on chart and document tasks. OCR and Chart samples were the ones most often removed as hallucinated.
  • Mixing and scaling:
    • Mixing unmodified and rewritten samples in 3:7 proportions performs slightly better than training solely on rewritten data.
    • Performance generally rises with data scale, measured in 2M-sample steps.
    • Larger rewrite models, such as InternVL2-Llama3-76B with Meta-Llama-3-70B-Ins, matter most for chart/document and preference tasks.
  • Release: The dataset, code, and model configurations are released openly (mammoth-vl.github.io).
