Direct Preference Optimization of Video Large Multimodal Models from Language Model Reward
Paper · 2025 · Ruohong Zhang, Liangke Gui, Zhiqing Sun et al.
Summary
Preference optimization methods like DPO help align language models, but they are hard to use for video LMMs. Judging whether an open-ended answer matches a video's content is difficult, and human or GPT-4V judgments are too expensive to scale. The authors replace the video with a detailed text description. A text-only model (ChatGPT) reads the caption, the question, the reference answer and a candidate response, writes a short rationale, and assigns a score. These scores then drive DPO training. To make this possible, they built SHAREGPTVIDEO, a corpus of 900k GPT-4V captions created by showing the model ten uniformly sampled frames per video. They also generated 900k instruction-following examples from it. The caption-based reward agrees well with GPT-4V scores computed directly from frames. Their model, LLaVA-Hound-DPO, built on the Video-LLaVA backbone, improves accuracy by 8.1% over its SFT counterpart on open-ended video QA. This offers a cheap, scalable route to aligning video models. The data, a preference set and the full training pipeline are released.
Key points
- Caption sources: WebVid (400k), VIDAL (450k) and ActivityNet (50k) videos, about 900k in total. Human checks put caption accuracy at roughly 80–90%.
- Preference data construction:
- 20k instructions were sampled, and the SFT model produced six answers for each at temperature 1.0, giving 120k responses.
- ChatGPT scored the responses, and the highest-scored answer was paired with the lowest.
- Groups were skipped when all answers fell on the same side of a score of 3.
- About 17k pairs were released.
- Self-play DPO, where ground truth is preferred and model output is dispreferred, scored about 3% below the SFT model. This suggests an explicit reward signal matters.
- Using the DPO model as a reranker of SFT samples plateaued near 62% on MSRVTT with 64 candidates. Direct generation with the DPO model reached 68.29%.
- An automated benchmark is proposed for development and tuning, but only as an indicative, not definitive, measure. Multiple-choice sets such as Video-MME were not evaluated.
