ALLaVA: Harnessing GPT4V-Synthesized Data for Lite Vision-Language Models

Paper · 2024 · Guiming Hardy Chen, Shunian Chen, Ruifei Zhang et al.

Summary

Lite vision-language models of about 4B parameters are cheap to train and run, but they usually trail 7B/13B LVLMs. The authors ask whether better training data can close that gap. They take web images from LAION, after filtering and deduplication, plus images from Vision-FLAN. GPT-4V then processes each image in a single "Captioning-then-QA" session: it writes a detailed caption, poses a complex question (Vision-FLAN images keep their original instructions), and answers it with the caption as extra context. This yields ALLaVA, an open dataset of 1.3M samples. Its captions are used for alignment pretraining and its question-answer pairs for visual instruction tuning, with text-only instruction data mixed in to limit catastrophic forgetting. The resulting ALLaVA models, built on Phi2, StableLM-2-1.6B and Phi-3-mini, beat comparable 4B-scale LVLMs on most of 17 benchmarks and match some 7B/13B models. The work shows that high-quality synthetic data can partly substitute for model size. It also gives the community a large, reusable resource.

Key points

  • Resource: ALLaVA-4V (1.3M GPT-4V-generated captions, instructions and answers) is released on Hugging Face (FreedomIntelligence/ALLaVA-4V), with code on GitHub.
  • Image sources: LAION web images and Vision-FLAN, which covers 191 VQA tasks drawn from 101 datasets. GPT-4V regenerates Vision-FLAN's short, uninformative human answers in fuller form.
  • Models: ALLaVA-Phi2, ALLaVA-StableLM2 and ALLaVA-Phi3 all use a CLIP vision encoder. ALLaVA-Phi3 is the strongest of the three.
  • Results: The models beat other 4B-scale LVLMs on 6 of 7 cognition benchmarks, including MathVista, MMMU and MM-Vet. On the text-only Vicuna-80, ALLaVA-Phi2 scores 49.4, while Mipha-3B and TinyLLaVA score 16.2 and 15.6 on the same Phi2 backbone.
  • Limitations: The generated answers are not always correct. The data also has little multilingual content or coverage of minority cultures, which matters for Ukrainian-language use.
