SFT or RL? An Early Investigation into Training R1-Like Reasoning Large Vision-Language Models
Paper · 2025 · Hardy Chen, Haoqin Tu, Fali Wang et al.
Summary
The authors examine whether the common recipe of supervised fine-tuning followed by reinforcement learning, popularised by DeepSeek-R1, also works for Large Vision-Language Models (LVLMs). To test this, they built VLAA-Thinking, an image-text reasoning dataset with two parts: an SFT split of step-by-step traces and a harder RL split. The data come from a six-stage pipeline. GPT-4o first writes detailed image captions. DeepSeek-R1 then reasons over each caption and question, and the resulting answers are rewritten and checked by a GPT-based verifier. On RL, they use GRPO with a mixed reward that combines rule-based checks with model-based scoring of open-ended answers.
Experiments show that SFT teaches the output format but pushes models into imitative "pseudo reasoning," with hesitant, wordy steps and fake self-reflection. Running SFT before RL reduces gains, while applying RL directly works best. Their VLAA-Thinker-Qwen2.5VL-3B ranks first among 4B-scale models on the Open LMM Reasoning Leaderboard. This suggests that multimodal reasoning develops through reward-driven learning rather than distillation.
Key points
- VLAA-Thinking dataset. It draws on 9 source datasets, including CLEVR-Math, Math PUMA, ArxivQA, DocVQA, VizWiz, ALLaVA-LAION, GeoQA170K (RL split only), and COCO and VisualGenome from LLaVA-CoT. Of 203,182 original items, 144,895 survive the pipeline. The final splits contain 126,413 SFT examples and 25,195 RL examples.
- Harm from SFT. Imitative SFT caused a 47% relative performance drop on 7B models. On aligned models, adding SFT before GRPO cut performance by 12.7% on average. Smaller SFT sets and larger models did not avoid this decline.
- Mixed reward design. The reward uses 5 functions across 2 reward types. Rule-based functions cover digit, multiple-choice, math and bounding-box answers. Open-ended answers are scored by XComposer-2.5-RM plus a reference-based method. On MathVision, MathVerse and WeMath, the mixed reward gave an average gain of 6.2% over the baseline. Removing the multiple-choice reward hurt the most.
- No link between length and quality. Longer responses and higher rewards did not predict better results. SFT-ed models began training with higher rewards but finished behind models trained with RL alone.
- Released resources. VLAA-Thinker-Qwen2.5VL-3B beats the previous best 4B-scale model by 1.8%. A 7B variant is also available, and both models and the dataset are released on Hugging Face under UCSC-VLAA.
