ViLBench: A Suite for Vision-Language Process Reward Modeling
Paper · 2025 · Haoqin Tu, Weitao Feng, Hardy Chen et al.
Summary
Process reward models (PRMs) score every reasoning step rather than only the final answer, which helps pick good solution paths. In the multimodal setting they have been studied far less than in text-only work. This paper first tests seven VLLMs, six open-weight and GPT-4o, as either output reward models (ORMs) or PRMs. The models act as judges in a Best-of-N setup across five vision-language benchmarks. Neither reward type wins everywhere, and a stronger VLLM is not reliably a stronger judge, especially for step-level scoring.
The authors then build ViLBench, a 600-item benchmark. Its items were selected by a panel of open-weight VLLMs to keep cases where step-wise feedback actually matters. Finally, they use an improved multimodal MCTS procedure to create ViLReward-73K, which contains 73.6K step-level reward samples. On this data they train ViLPRM, a 3B discriminative PRM, which beats standard CoT and other PRMs on ViLBench. The work offers a dedicated testbed and a training resource for step-level multimodal reward modeling.
Key points
- Benchmarking covered MMStar, MathVista, MathVerse, MMMU Pro and RealWorldQA, with GPT-4o generating the candidate solutions.
- ORMs did slightly better on the four math- and formal-reasoning sets.
- PRMs led by about 1.7% on RealWorldQA.
- Averaging rewards over the last 2–4 steps worked better than using pure ORM or pure PRM scores.
- On MathVerse, reward models helped on text-dominant problems (about +3 points over greedy decoding) but hurt on visual-dominant ones (about −2 points).
- ViLBench is hard for current models: GPT-4o with CoT reaches only 27.3% accuracy, and it gains 3.0% more from PRM rewards than from ORM rewards.
- When selecting among OpenAI o1 generations, ViLPRM (3B) gives an average gain of 3.3% over CoT and up to 2.5% over its untrained base model.
- On VisualProcessBench, ViLPRM scores 68.8 versus 66.5 for VisualPRM (8B). VisualPRM was trained on about 400K samples, compared with 73K for ViLPRM.
