Can 1B LLM Surpass 405B LLM? Rethinking Compute-Optimal Test-Time Scaling

Summary

The paper asks how extra inference-time computation should be spent and whether small models can beat much larger ones when it is spent well. The authors note that earlier test-time scaling (TTS) work rarely examined how three factors interact: the policy model, the Process Reward Model (PRM) used as verifier, and problem difficulty. They run broad experiments on MATH-500 and AIME24. Policy models range from 0.5B to 72B across two families, and PRMs range from 1.5B to 72B. They compare Best-of-N, beam search and Diverse Verifier Tree Search (DVTS). Conceptually, they extend compute-optimal TTS so that it accounts for the reward model, since a PRM trained on another policy can mislead the search. They also define difficulty by absolute accuracy rather than relative quantiles. The best strategy turns out to depend strongly on the policy, the PRM and the difficulty. When it is tuned correctly, tiny models can outperform giants. This suggests that adapting inference to the task can substitute for parameter count.

Key points

  • The study proposes "reward-aware" compute-optimal TTS. A case study with Llama-3.1-8B-Instruct showed RLHFlow-PRM-Mistral-8B favouring short, wrong answers, while RLHFlow-PRM-Deepseek-8B reached correct answers but used more tokens.
  • Difficulty uses fixed Pass@1 bands: easy (50–100%), medium (10–50%) and hard (0–10%). Quantiles were dropped because Qwen2.5-72B-Instruct exceeds 80% Pass@1 on 76.2% of MATH-500 problems.
  • With tuned TTS, a 1B model beats a 405B model on MATH-500. On both benchmarks, Llama-3.2-3B-Instruct surpasses Llama-3.1-405B-Instruct and GPT-4o, and a 0.5B model outperforms GPT-4o.
  • DeepSeek-R1-Distill-7B beats o1 on MATH-500 and AIME24 and outperforms DeepSeek-R1 on AIME24. DeepSeek-R1-Distill-1.5B tops o1-preview on both benchmarks.
  • A 7B PRM can effectively guide a 72B policy, which points toward "weak-to-strong" supervision. Stated limitations are that only math tasks were tested, with coding and chemistry left as future work.
