Multimodal ArXiv: A Dataset for Improving Scientific Comprehension of Large Vision-Language Models
Summary
Open-source large vision-language models (LVLMs) handle natural photos well but often fail on abstract visuals such as scientific plots and geometric diagrams. The authors attribute this mainly to a lack of suitable scientific training data. To address it, they build Multimodal ArXiv from arXiv preprints, which carry a CC-0 license.
The first part, ArXivCap, pairs figures with captions. It is extracted from LaTeX sources of papers that Semantic Scholar lists as peer-reviewed. The data is cleaned with rules and keeps the sub-figure structure and paper titles. The second part, ArXivQA, consists of multiple-choice questions that GPT-4V wrote about ArXivCap figures.
Fine-tuning Qwen-VL-Chat on ArXivQA substantially raises its score on MathVista. ArXivCap also supports four new vision-to-text benchmark tasks. On these, current models, including GPT-4V and Gemini 1.0 Pro Vision, perform poorly, while in-domain training helps on every task. A manual error study points to three main weaknesses: misreading the figure's context, recognition mistakes, and captions that are too generic. The released data and models give the field a large, multi-domain resource for scientific figure understanding.
Key points
- ArXivCap size and coverage: 6.4M images and 3.9M captions from 572K arXiv papers (sources before June 2023), spanning 32 domains. It is larger than SciCap, M-Paper and FigCAP.
- ArXivQA: about 100K GPT-4V-generated multiple-choice QA pairs. Tuning Qwen-VL-Chat on it gives a 10.4% absolute accuracy gain on MathVista.
- Four benchmark tasks:
- single-figure captioning
- summarizing multiple sub-figures
- in-context captioning from earlier figure-caption pairs
- predicting a paper's title from its figures and captions
- Error analysis: in a manual check of 100 generated captions, only 16% were acceptable. Contextual misinterpretation was the most common error, followed by oversimplification (23%) and recognition errors (19%).
- Availability: datasets and models are released at mm-arxiv.github.io.
