mPLUG-Owl3: Towards Long Image-Sequence Understanding in Multi-Modal Large Language Models
Paper · 2024 · Jiabo Ye, Haiyang Xu, Haowei Liu et al.
Summary
Most multimodal LLMs handle one image well but falter on long image sequences, such as retrieved image-text examples, interleaved dialogues or hours-long video. Methods like LLaVA-Next-Interleave and Mantis append every visual token to the text stream, which inflates memory and latency. Flamingo's Perceiver-based compression avoids that cost but loses fine visual detail. mPLUG-Owl3 (Alibaba Group) keeps a common pipeline of a Siglip-400m encoder, a linear projection and a Qwen2 decoder. It differs in how image features enter the model: through cross-attention rather than through the context window. A few decoder layers become Hyper Attention Transformer Blocks, which run cross-attention to visual features in parallel with ordinary self-attention. These blocks reuse the text query and the existing LayerNorm, initialize key/value weights from the language model, and add MI-Rope to track where each image appeared. Across twenty benchmarks the model leads its size class on most of them. The authors also introduce a Distractor Resistance test for long visual inputs. The design makes long multi-image and video understanding much cheaper without sacrificing accuracy.
Key points
- Architecture: Siglip-400m vision encoder, linear projection, and Qwen2 language model.
- Only four Qwen2 layers ([0, 9, 17, 25]) are converted into Hyper Attention Transformer Blocks (HATB), keeping the number of added parameters small.
- HATB components:
- a shared input LayerNorm, which converged better than a separate visual one;
- modality-specific key/value projections initialized from the LM's KV weights;
- the self-attention query reused for cross-attention;
- Multimodal-Interleaved Rotary Position Embedding (MI-Rope), which preserves image positions.
- Evaluation covers 20 benchmarks: 5 VQA, 5 general MLLM, 4 video and 6 multi-image tasks. mPLUG-Owl3 is state-of-the-art among same-size models on 14 of them.
- New evaluation: Distractor Resistance measures whether a model stays focused on the relevant content within long, distractor-filled visual sequences.
- Code and models are released at github.com/X-PLUG/mPLUG-Owl. Demos include multimodal RAG, long interleaved dialogues and question answering over a 2-hour movie.
