Mini-Gemini: Mining the Potential of Multi-modality Vision Language Models

Paper · 2024 · Yanwei Li, Yuechen Zhang, Chengyao Wang et al.

Summary

Open vision language models still trail proprietary systems such as GPT-4 and Gemini. The common remedy, feeding more visual tokens from higher-resolution images, sharply raises compute costs. Mini-Gemini narrows this gap on an academic budget in three ways. First, it combines two vision encoders. A CLIP-pretrained ViT encodes a downscaled image, while a LAION-pretrained convolutional network processes the full-resolution version. A "patch info mining" step lets each low-resolution token query its corresponding high-resolution region through attention. This injects fine detail without increasing the number of tokens the LLM receives. Second, the authors build a richer training mix from public sources, combining stronger answers, instructions aimed at specific tasks, and data for image generation. Third, the LLM learns to write prompts for an external diffusion model (SDXL), so it can produce images guided by reasoning as well as text. The framework works with dense and MoE LLMs from 2B to 34B parameters and reports leading zero-shot results. This suggests competitive multimodal understanding and generation are possible with modest resources.

Key points

  • Dual-encoder design: low-resolution features act as queries, and high-resolution CNN features supply keys and values. Detail improves while the visual token count stays fixed.
  • Generation through re-captioning: only 13K pure-text samples teach the LLM to rewrite user requests into prompts for SDXL. According to the authors, this does not degrade core VLM performance. DALLE 3 can also be plugged in.
  • Model sizes: the framework is instantiated with dense and MoE language models from 2B to 34B parameters, including Mixtral among the base LLMs.
  • Benchmark results: the authors report surpassing Gemini Pro, Qwen-VL-Plus and GPT-4V on the MMB and MMMU benchmarks.
  • Comparisons and release: qualitative comparisons with ChatIllusion and LLMGA cover interactive, multi-round image generation. Code and models are published at github.com/dvlab-research/MiniGemini.
