MuRAG: Multimodal Retrieval-Augmented Generator for Open Question Answering over Images and Text

Paper · 2022 · Wenhu Chen, Hexiang Hu, Xi Chen et al.

Summary

Retrieval-augmented language models such as REALM, RAG, FiD and RETRO fetch knowledge from an external index rather than storing everything in their parameters. However, they search only text, so facts that appear mainly in pictures stay out of reach. MuRAG extends this approach to a multimodal memory of images, captions and passages. A shared backbone joins a ViT image encoder with T5. It embeds both queries and memory items, and maximum inner product search over a pooled [CLS] vector selects the top-K entries. These are concatenated with the question and decoded into an answer. Pre-training mixes LAION, Conceptual Captions, VQA and PAQ under joint contrastive and generative objectives. Fine-tuning runs in two stages: first with a cheap in-batch memory, then with a statically indexed global memory. On WebQA and MultimodalQA, MuRAG beats earlier systems by 10–20 absolute points in both distractor and full-wiki settings. The work shows that open QA gains from retrieving visual knowledge, and it identifies visual understanding as the main remaining weakness.

Key points

  • Backbone: ViT splits images into 16x16 patches, giving 196 tokens per image. These are fused with text embeddings in a T5-initialized encoder that serves both retrieval and generation.
  • Pre-training data: LAION, Conceptual-Caption 12M+3M, VQA and PAQ, recast into a retrieve-and-predict format with in-batch negatives.
  • Evaluation covers WebQA and MultimodalQA. The distractor setting uses 40+ candidates and the full-wiki setting about 1M candidates, and MuRAG gains 10–20% absolute over baselines in both.
  • Ablation: the two-stage pipeline scores 31.5 on WebQA (overall) and 51.4 on MultimodalQA (EM-all).
    • Using only in-batch training costs about 2 points.
    • Freezing the pre-trained retriever drops scores to 25.8 and 40.7.
  • Human study of 200 WebQA outputs:
    • Accuracy on image queries (64% distractor, 54% full-wiki) lags well behind text queries (80% and 72%).
    • Counting causes 52% of image-query errors and object recognition causes 29.4%.
