Improve Vision Language Model Chain-of-thought Reasoning

Paper · 2025 · Ruohong Zhang, Bowen Zhang, Yanghao Li et al.

Summary

Most training data for vision language models (VLMs) pairs images with very brief answers and little explanation. The authors show that this limits chain-of-thought (CoT) ability. Fine-tuning on short ChartQA answers improved direct prediction but barely changed CoT accuracy.

They propose a two-stage post-training recipe that makes better use of short-answer data:

  • Stage 1 (SFT): GPT-4o writes rationales that reach the known correct answers across nine VQA datasets. The result is the 193k-example ShareGPT-4o-Reasoning resource, used to fine-tune LLaVA-Reasoner-SFT.
  • Stage 2 (DPO): The original short answers act as outcome rewards. Self-generated reasoning chains are labeled as correct or incorrect against them, forming preference pairs for Direct Preference Optimization. This produces LLaVA-Reasoner-DPO.

The DPO model improves on its SFT counterpart in every domain. It also works as a reward model for re-ranking candidate answers, and it assigns token-level credit that pinpoints reasoning errors. The work matters because it improves multimodal reasoning without extra human reward labels, and the data, code and checkpoints are publicly released.

Key points

  • Training on 26k ChartQA direct answers raised direct accuracy from 70.2 to 73.1, while CoT accuracy only moved from 71.2 to 71.8.
  • ShareGPT-4o-Reasoning (193k examples) draws on nine datasets:
    • A-OKVQA, ChartQA, DocVQA, InfoVQA and TextVQA;
    • AI2D, SQA, MathVision and G-LLaVA;
    • examples where GPT-4o's answer disagreed with the ground truth were removed.
  • Distilled CoT responses typically run about 100 tokens, compared with under 5 tokens for direct answers.
  • The base model is LLaMA3-LLaVA-NeXT-8B, initialized from Open-LLaVA-NeXT weights. DPO uses β = 0.1.
  • As a verifier on MMMU, the DPO model beats SFT self-consistency, which peaks at 45.5% with 64 votes. A DPO model trained on RLAIF-V data shows no such re-ranking gains.
