Macaw-LLM: Multi-Modal Language Modeling with Image, Audio, Video, and Text Integration
Paper · 2023 · Chenyang Lyu, Minghao Wu, Longyue Wang et al.
Summary
Instruction-tuned LLMs are strong on text, but how well they handle other kinds of input is still underexplored. Macaw-LLM, from Tencent AI Lab with Dublin City University and Monash University, combines image, video, audio and text in one model. The design has three parts. Modality encoders turn non-text inputs into feature vectors. A pretrained LLM serves as the "cognitive" core and also encodes text. An alignment component maps the encoder outputs into the LLM's embedding space, so they can be placed in front of the token sequence. Because the aligned features already resemble the LLM's own embeddings, training needs only one instruction fine-tuning stage. Earlier systems first train a projection layer and only then tune on instructions. The authors also build a multi-turn dialogue instruction dataset covering images and videos, generated with GPT-3.5-Turbo. Data, code and model are publicly released. The provided excerpt reports no benchmark scores, so the paper's contribution here is mainly the architecture and the open multi-modal resource.
Key points
- Components: CLIP-ViT-B/16 encodes images and video frames, WHISPER-BASE encodes audio, and LLaMA-7B is the language backbone.
- Alignment pipeline: a 1-D convolution shortens each modality's features to a small fixed length. A linear layer then resizes them to LLaMA's embedding dimension. Finally, an attention step (built on multi-head self-attention) relates them to the LLM's embedding matrix.
- Training uses a single stage of instruction fine-tuning, in contrast to the two-stage pipelines of MiniGPT-4, LLaVA and InstructBLIP.
- The Macaw-LLM instruction dataset contains about 69K image instances and 50K video instances in multi-turn dialogue form, produced with GPT-3.5-Turbo.
- Resources are released at github.com/lyuchenyang/Macaw-LLM (arXiv:2306.09093, June 2023).
