Insight Over Sight: Exploring the Vision-Knowledge Conflicts in Multimodal LLMs
Paper · 2025 · Xiaoyuan Liu, Wenxuan Wang, Youliang Yuan et al.
Summary
The paper investigates how multimodal LLMs behave when an image contradicts everyday commonsense they absorbed during training. One example is a picture of a waitress doing something unusual in a kitchen, where the model still answers "washing dishes." The authors built a semi-automatic pipeline with human checks. It extracts ⟨Subject, Action, Place⟩ triplets from an image-captioning corpus, recombines them into rarely co-occurring scenes, synthesizes matching images with a text-to-image model, and generates questions. The result is the CONFLICTVIS benchmark.
Testing nine MLLMs showed that in roughly a fifth of queries, models ignore the visual evidence and fall back on stored knowledge. This happens most often with Yes-No questions and action-related conflicts. Chain-of-Thought reasoning tends to make the problem worse, while a simple "Focus-on-Vision" (FoV) prompt helps. No tested method fully removes the conflict. The work matters because this kind of knowledge-driven hallucination undermines trust in MLLMs. The pipeline can also be scaled to produce more conflict data.
Key points
- CONFLICTVIS contains 374 original images and 1,122 manually verified QA pairs. It covers two conflict targets and three question formats: Yes-No, Multiple-Choice, and Open-Ended.
- Nine MLLMs from five families were evaluated, including GPT-4o, Claude-3.5-Sonnet, LLaVA-1.5-13B, LLaVA-NeXT-34B, and Qwen-VL-Chat.
- Claude-3.5-Sonnet relied on memorized knowledge in 43.6% of Yes-No cases. Across models, action conflicts averaged a 23.8% memorization ratio, which is 10.4 points above place conflicts.
- FoV prompting raised LLaVA-NeXT-34B's average accuracy from 84.6 to 89.4, while CoT dropped it to 67.7. VCD and PAI also gave gains, but LLaVA-1.5-13B and Qwen-VL-Chat still erred on 13.2% and 15.7% of items, respectively, under their best method.
- Co-occurrence probabilities were estimated with Vicuna-1.5-13B, which the authors acknowledge may introduce model-specific bias.
