LMMs-Eval: Reality Check on the Evaluation of Large Multimodal Models

Paper · 2025 · Kaichen Zhang, Bo Li, Peiyuan Zhang et al.

Summary

Evaluation of large multimodal models (LMMs) is currently fragmented. Each model release tends to use its own scripts for data preparation, answer extraction and scoring, so reported numbers are often not comparable. The authors argue that benchmarks face a trilemma: broad coverage, low cost and freedom from contamination cannot all be achieved at once, only traded off.

They contribute three resources:

  • LMMs-Eval is a unified, reproducible toolkit modelled on lm-eval-harness. It runs many models on many datasets with a single command and logs every output.
  • LMMs-Eval Lite cuts evaluation cost by keeping a representative subset of each benchmark, chosen through coreset selection.
  • LiveBench builds fresh test questions each month from news and forum sites. Because the content postdates model training, it measures zero-shot generalization without contamination.

On LiveBench, commercial models such as GPT-4o lead clearly over open-source ones. This suggests that strong open-model scores on static benchmarks like MME or MMBench may partly reflect easy, fixed or leaked test data.

Key points

  • LMMs-Eval covers more than 50 tasks and over 10 model families (about 30 variants). It supports both perplexity-based and generation-based answer scoring, applies each model's chat template, and logs setups, generations and score breakdowns.
  • LMMs-Eval Lite treats subset selection as a k-Center problem, solved with a greedy 2-OPT approximation. Each item is represented by CLIP image embeddings concatenated with BGE-M3 text embeddings. The costs of full runs were measured on 8×A100 GPUs.
  • LiveBench pipeline:
    • About 500 candidate questions are generated per month.
    • A scorer rates them on authenticity, logical coherence and clarity (1–10).
    • 100–300 questions are kept after a threshold and manual review.
    • GPT-4o grades answers using criteria adapted from LLaVA-Wilder and Vibe-Eval.
  • LiveBench-2024-09 overall scores: GPT-4o 92.0, GPT4o-mini 91.9, Claude-3.5-sonnet 90.3, Qwen2-VL-72B 85.9 (best open model), LLaVA-1.5-7B 30.2.
  • Code and the LiveBench leaderboard are open-sourced. A stated limitation is that the contamination analysis requires access to training data.
