mPLUG-DocOwl 1.5: Unified Structure Learning for OCR-free Document Understanding

Paper · 2024 · Anwen Hu, Haiyang Xu, Jiabo Ye et al.

Summary

Multimodal LLMs that read document images without an external OCR engine can usually recognize text, but they often miss how that text is organized. Layouts, table grids and chart axes carry much of the meaning in documents. The authors propose Unified Structure Learning, a training stage with two task types. Structure-aware parsing has the model transcribe images while keeping their layout: line breaks and spacing for documents and webpages, and extended Markdown for tables and charts. Multi-grained text localization links text to bounding boxes. To support this, they built DocStruct4M from openly available images drawn from five areas: natural images, charts, tables, webpages and documents. They also introduce H-Reducer, a vision-to-text connector that uses a convolution to merge horizontally adjacent visual patches. This shortens the visual sequence while keeping spatial layout. The resulting model, DocOwl 1.5, is trained in two stages: structure learning first, then multi-task tuning on downstream tasks. It reports state-of-the-art OCR-free results on 10 visual document understanding benchmarks. Code, models and data are publicly released.

Key points

  • Training data: DocStruct4M is built from publicly available images and covers five domains. It pairs structure-aware text sequences with multi-grained text–bounding-box examples.
  • Connector: H-Reducer applies a single 1x4 convolution, followed by a fully connected layer. It outperformed 2x2 and other window sizes, as well as Abstractor, in ablations, including on the authors' localization test set DocLocal4K.
  • Efficiency motivation: Encoding a 1,344x1,344 image with ViT/L-14 produces 9,216 visual tokens. Even with H-Reducer, one high-resolution image can still take up to 2,560 tokens, which limits multi-page use.
  • Ablation findings:
    • Parsing-based structure learning brought large gains across domains.
    • Unfreezing the LLM added only slightly more.
    • Textual tokens such as <rowx-coly> worked better than learned crop-position embeddings.
    • Adding localization tasks gave the best results.
    • Two-stage training beat joint one-stage training.
  • Result: DocOwl 1.5 is reported as the OCR-free state of the art on 10 benchmarks, including DocVQA, TabFact and ChartQA. It is released at the X-PLUG/mPLUG-DocOwl GitHub repository.
