TableLlama: Towards Open Large Generalist Models for Tables
Paper · 2023 · Tianshu Zhang, Xiang Yue, Yifei Li et al.
Summary
Methods for table tasks such as entity linking, column type annotation and table QA usually need table-specific pretraining or custom architectures. Many also handle only narrow table types or rely on simplified synthetic data. The authors test whether one instruction-tuned LLM can act as a generalist across many table tasks. They build TableInstruct, a benchmark for instruction tuning and evaluation. It uses real Wikipedia tables and spreadsheets from statistical reports, semantic types from Freebase and candidate entities from Wikidata. Every task was converted to a shared format and given hand-written instructions. Because inputs are often very long, they fine-tune Llama 2 (7B) with LongLoRA, which yields TableLlama. With no table-specific design, the model equals or beats task-specialised state-of-the-art systems on nearly every in-domain task. It also improves strongly over its base model on unseen datasets. The released data and model give researchers an open baseline for general-purpose table reasoning, as an alternative to closed systems such as GPT-4.
Key points
- TableInstruct covers 14 datasets and 11 tasks. Training uses 8 tasks, with about 2.6M instances drawn from 1.24M tables, covering table interpretation, table augmentation, table QA and fact verification.
- Evaluation has two settings: 8 in-domain datasets, and 6 held-out datasets spanning 4 tasks. The held-out tasks include hybrid table–passage QA, highlighted-cell description and table-grounded dialogue.
- On 7 of the 8 in-domain tasks, TableLlama performs on par with or better than the respective SOTA, even though those systems often rely on specialised designs such as TURL, TUTA or TaBERT.
- On the 6 out-of-domain datasets, TableLlama gains 5–44 absolute points over the base model. Against GPT-4 in zero-shot evaluation, it narrows the gap or wins on 4 of the 6 datasets.
- Data, code and model are publicly released. Acknowledged gaps include tasks that TableInstruct does not cover, such as data imputation and table classification.
