Rethinking Reading Order: Toward Generalizable Document Understanding with LLM-based Relation Modeling

Paper · 2026 · Weishi Wang, Hengchang Hu and Daniel Dahlmeier

Summary

Most layout-aware document models read text in the order an OCR engine outputs it. That order follows engine heuristics, not the way a person would read the page. Earlier attempts to model human reading order (RO) relied on manual annotation, which is expensive, inconsistent and biased toward links between neighbouring elements.

The authors, from SAP, instead prompt LLMs (text-only or with the page image) to infer document-wide RO relations between layout elements without supervision. These relations are fed into the models in two ways:

  • Compact backbones (LayoutLMv3, GeoLayoutLM) receive them through a lightweight RO-aware attention that combines a local and a global RO matrix.
  • GPT-4o receives them through its prompts.

The approach was tested on Semantic Entity Recognition, Entity Linking (EC-FUNSD) and generative QA (DocVQA, InfoVQA). LLM-inferred RO usually beats both no-layout baselines and human-annotated RO, especially for Entity Linking. This holds even though the inferred RO matches the gold adjacency labels less closely. The authors conclude that global structure matters more than local adjacency, and that current RO metrics may reward the wrong thing.

Key points

  • Cost: Inferring RO for 6,000 pages took about 0.7 GPU-hours, versus roughly 25 hours of human annotation. After caching, it adds under 0.5 ms per instance and less than 1% extra parameters.
  • EC-FUNSD Entity Linking (F1):
    • LayoutLMv3-base: 61.11 with no layout, 64.34 with human RO, 65.33 with GPT-4o-text RO.
    • GeoLayoutLM-large: 86.71 with human RO, 87.45 with GPT-4o-multimodal RO.
  • Baseline: A supervised global-pointer ROP model (RORE) serves as the reading-order prediction baseline. The LLMs compared include Gemma-2, Mistral, GPT-4o/4v, Gemini and Claude-3.5-sonnet.
  • QA alignment: On zero-shot question–document cosine similarity, GPT-4o reordering beats baseline-ROP ordering by 0.60 points on DocVQA and 2.73 points on InfoVQA. On InfoVQA it still falls below the original order (46.53 vs 47.74), which the authors attribute to the dataset's focus on reasoning and counting.
  • Limitations and release: OCR errors and compute cost limit use on long or multi-page documents. Code and the generated RO data will be released after SAP's internal review.
