Doc-React: Multi-page Heterogeneous Document Question-answering

Paper · 2025 · Junda Wu, Yu Xia, Tong Yu et al.

Summary

Doc-React tackles question answering over long documents whose pages mix text, charts and images in irregular layouts. Single-pass multimodal RAG often fails here. When a question refers to an entity only indirectly, the system does not retrieve the pages needed to resolve it. The authors treat the task as an information-optimization problem: choose groups of page images that together carry enough evidence for the answer while keeping the MLLM's output uncertainty low. Doc-React runs in rounds, in the style of ReAct. In each round, GPT-4o acts as judge and generator. It summarizes what is still missing and turns that gap into sub-queries. A multimodal retriever (ColPali) supplies an InfoNCE-based lower bound on mutual information. Candidate page sets are then scored by this gain divided by generation entropy, and the best set is added greedily. On SlideVQA, Doc-React beats both multimodal RAG and multi-image MLLM baselines. On MMLongBench, it beats the RAG baselines but trails GPT-4o reading the full document. The work shows that iterative, uncertainty-aware retrieval helps when documents are too large to feed whole into a model.

Key points

  • Objective: each step selects the page subset that maximizes mutual-information gain normalized by entropy. The "residual information" left to find is estimated by the MLLM using a differentiation prompt.
  • Baselines: the two RAG baselines are ColPali and VisRAG-Ret. The multi-image MLLM baselines are GPT-4o, InternVL and MiniCPM, each run plain and with CoT.
  • Main results (Doc-React with GPT-4o): MMLongBench F1 38.07 / Acc 38.29; SlideVQA F1 54.87 / Acc 55.04.
    • The strongest RAG baseline, ColPali with GPT-4o, reaches 32.17/30.76 on MMLongBench and 53.42/52.33 on SlideVQA.
    • GPT-4o given the full context scores higher on MMLongBench (42.00/41.71) but lower on SlideVQA (53.58/53.41).
  • Ablation: replacing ColPali with a weaker retriever still yields 37.22/37.37 on MMLongBench and 54.12/54.29 on SlideVQA. Both beat plain ColPali, so the gains come from the framework and not only from the retriever.
  • Dataset inconsistency: the experimental setup text names SlideVQA and VisualWebBench, but all result tables report MMLongBench and SlideVQA.
