MMLongBench-Doc: Benchmarking Long-context Document Understanding with Visualizations

Paper · 2024 · Yubo Ma, Yuhang Zang, Liangyu Chen et al.

Summary

Large vision-language models (LVLMs) perform well on single-page document QA. It has been unclear how they handle real documents that run to dozens of pages, where an answer must first be located in a large mass of content and sometimes combined from several pages. Earlier multi-page datasets are short, low in information density, or rarely require cross-page reasoning. The authors therefore built MMLongBench-Doc. It contains 135 PDF documents from 7 domains, averaging 47.5 pages and roughly 21K text tokens each. Some documents come from four existing datasets and the rest were newly gathered. Ten expert annotators wrote or revised 1,082 questions, which then passed a three-round semi-automatic review. Each question records its evidence pages, evidence source (text, layout, chart, table, image) and answer format. The authors gave page screenshots to 14 LVLMs and OCR text to 10 LLMs. The task proved largely unsolved: GPT-4o reached only 44.9% F1, and most LVLMs scored below text-only LLMs reading imperfect OCR output. The benchmark gives a concrete target for long-context multimodal models.

Key points

  • Question mix: 494 single-page, 365 cross-page (~33.7%) and 223 unanswerable (~20.6%) questions; 184 adapted from existing datasets (e.g., ChartQA, DUDE, SlideVQA, FinanceBench) and 898 newly written.
  • Main scores: GPT-4o 44.9% F1 and GPT-4V 30.5%. Every other LVLM did worse than its OCR-fed LLM counterpart; Gemini-1.5-Pro and Claude-3-Opus scored 4.2 and 6.4 points higher with OCR text. The best open-source LVLM trailed the best open-source LLM by 11.7 points.
  • Oracle setting: on 820 answerable questions, models received only the evidence pages. Gemini-1.5-Pro and InternLM-XC2-4KHD improved by over 20 points (up to ~30 on single-page questions), yet still reached only ~40% and ~30%. GPT-4o gained about 10 points.
  • Difficulty patterns: all models scored higher on single-page than on cross-page questions. Accuracy generally fell as evidence appeared later in the document.
  • GPT-4o error analysis (72 cases): hallucinated evidence 33%, perceptual errors 28%, irrelevant answers 11%, incomplete evidence 10%, extractor errors 10%, reasoning errors 5%, knowledge lacking 3%.
