Monkey: Image Resolution and Text Label Are Important Things for Large Multi-modal Models

Paper · 2023 · Zhang Li, Biao Yang, Qiang Liu et al.

Summary

Large multimodal models (LMMs) usually see images at low resolution, such as 448×448, and are pretrained on short, shallow captions from corpora like LAION, COYO and CC3M. Both limits hurt their reading of small objects and dense text. Monkey raises the input resolution without costly pretraining from scratch. It cuts a large image into tiles that match the native resolution of an already trained ViT encoder. Each tile gets its own LoRA adapter. A downscaled copy of the whole image supplies global context, and a shared cross-attention resampler passes features from tiles and global view to the LLM. The authors also built an automatic pipeline that combines several off-the-shelf models to replace brief captions with layered, detailed descriptions. Across 18 benchmarks, Monkey is competitive or better in captioning and in general, scene-text and document VQA. In qualitative dense-text examples it compares favourably with GPT4V. The work shows that higher resolution only pays off fully when the text supervision is detailed enough.

Key points

  • Resolution: a sliding window splits the input into 448×448 patches, reaching up to 1344×896. All patches share one frozen encoder (e.g., Vit-BigG, about 2b parameters), with separate LoRA adapters per patch. Language-model input length caps this at six patches.
  • Caption pipeline:
    • BLIP2 writes global captions, and the original CC3M annotations are kept.
    • GRIT describes regions, PPOCR extracts text, and SAM segments objects.
    • BLIP2 then filters out mismatched pairs.
    • ChatGPT merges everything into rich descriptions.
  • Training data: about 1.44m samples, drawn entirely from public datasets (e.g., DocVQA, TextVQA, OCRVQA, VQAV2, ChartQA).
  • Ablation on LLaVA1.5 (ViT-L + Vicuna13B), swapping CC3M captions for the generated ones:
    • At 448 resolution, TextVQA rises from 60.2 to 62.0 and MMVet from 33.6 to 36.2.
    • At 224 resolution, the gains are marginal.
  • Adapters: using four LoRA modules beats one shared LoRA, which in turn beats having no LoRA, with notable gains on STVQA.
