A Survey on Test-Time Scaling in Large Language Models: What, How, Where, and How Well?
Paper · 2025 · Qiyuan Zhang, Fuyuan Lyu, Zexu Sun et al.
Summary
Gains from enlarging pretraining data and model size are slowing, so research has shifted toward spending extra computation at inference. This approach is called test-time scaling (TTS). Interest grew sharply after reasoning models such as o1 and DeepSeek-R1, but the literature lacked a systematic overview. This survey organizes TTS work along four orthogonal axes:
- What is scaled: parallel, sequential, hybrid or internal computation.
- How scaling is achieved: training-side tuning, and inference-side techniques such as stimulation, verification, search and aggregation.
- Where it is applied: reasoning-heavy domains and general tasks.
- How well it works: evaluation of various properties, including efficiency.
The authors place many representative works into this scheme, identify development trends and give practical deployment advice. They also outline open problems: scaling further, explaining why individual techniques help, extending TTS to more tasks and optimizing additional properties. The taxonomy is meant to be extensible and is maintained publicly. It gives the community a shared vocabulary for comparing inference-time methods.
Key points
- What to scale has four categories:
- Parallel: Self-Consistency, Best-of-N.
- Sequential: Self-Refine, ReAct, budget-aware methods like s1's Budget Forcing.
- Hybrid: Tree of Thoughts, Graph of Thoughts, MCTS, REBASE, rStar-Math.
- Internal: DeepSeek-R1, OpenAI-o1/o3, QwQ, K1.5, LIMO, Sky-T1.
- How to scale, tuning side:
- SFT, e.g., distillation and synthesized long CoT.
- Reward-model-free RL, e.g., rule-based rewards, DPO variants, DAPO.
- Reward-model-based RL, e.g., PPO, GRPO, PRIME, REINFORCE++.
- How to scale, inference side:
- Stimulation via prompting, decoding or latent methods such as Coconut.
- Verification at outcome or process level.
- Search: tree, MCTS, beam and lookahead.
- Aggregation by selection (majority voting) or fusion.
- Benchmarks covered:
- Math: AIME, MATH500, GSM8K, FrontierMath, OmniMath.
- Code: LiveCodeBench, SWE-bench, Codeforces, USACO.
- Science: OlympiadBench, TheoremQA, JEEBench.
- Appendix formalizations: Self-Refine is described as a feedback–revision loop. ToT is framed as state-space search with BFS/DFS, bounded by depth and branching factor. The resources are at testtimescaling.github.io (arXiv v3, May 2025).
