REINFORCE++: Stabilizing Critic-Free Policy Optimization with Global Advantage Normalization
Paper · 2025 · Jian Hu, Jason Klein Liu, Haotian Xu et al.
Summary
Critic-free reinforcement learning methods for aligning LLMs, such as GRPO and RLOO, avoid the memory and compute cost of PPO's value network. However, they compute advantages by normalizing rewards only within the few responses sampled for each prompt. The authors argue that this local scheme is statistically biased. It also becomes unstable when the rewards in a group are nearly identical, and it trains the policy to beat other answers to the same prompt instead of scoring well overall. REINFORCE++ instead normalizes advantages using statistics from the whole training batch, and this bias shrinks as the batch gets larger. The paper offers two variants. The basic version (k ≥ 1, typically one sample per prompt) targets general RLHF. REINFORCE++ w/ Baseline first subtracts the group-mean reward, then applies global normalization and a k2-style KL loss, and is meant for reasoning and agent tasks. Built in OpenRLHF, both variants showed more stable training and better out-of-distribution generalization. On tool-use math benchmarks, the Baseline variant beat both GRPO and PPO. This makes it a cheap and robust default option for RL post-training.
Key points
- The paper gives a formal argument (Appendix A) that GRPO's per-prompt normalization by mean and standard deviation is biased. The reason is that the centered reward and the local standard deviation are statistically dependent.
- The general RLHF setup used Llama-3-8B-SFT as the policy, a Bradley-Terry reward model trained on about 700K preference pairs, and 20,000 training prompts.
- On agentic tool-use benchmarks (AIME 2024/2025, HMMT 2024/2025, CMIMC; average@32), REINFORCE++ w/ Baseline averaged 24.10. GRPO scored 22.58 and PPO scored 21.85.
- With the critic removed, λ = γ = 1, and batch-level normalization used in place of a value function, REINFORCE++ w/ Baseline is formally a simplified PPO.
- Other work also supports global normalization: ScaleRL, LitePPO and DLER report better efficiency or stability than with group-level normalization.
