From Decoding to Meta-Generation: Inference-time Algorithms for Large Language Models

Paper · 2024 · Sean Welleck, Amanda Bertsch, Matthew Finlayson et al.

Summary

Most LLM progress has been credited to spending more compute during training. The gains from spending compute at inference time have been studied by separate communities that use inconsistent terminology. This survey by Welleck and colleagues (CMU, USC, EleutherAI, Meta FAIR, University of Washington) organizes that literature under one mathematical framework. It is a review rather than an experimental study, so it introduces no new data or model. The authors separate three layers:

  • token-level decoding methods, which need some access to model internals such as logits;
  • meta-generation programs, which treat the LLM as a black box and combine repeated calls with control flow, search, refinement, and outside signals such as tools, verifiers, or other models;
  • efficiency techniques that lower token cost and latency.

The main contribution is a shared taxonomy linking classical NLP decoding, recent LLM reasoning work, and ML systems research. It gives practitioners a map of compute–quality trade-offs and highlights open questions such as compute-optimal inference.

Key points

  • Token-level algorithms (§3) fall into four groups: MAP decoding (greedy, beam search), sampling with adapters (e.g., nucleus and η-sampling), controlled generation, and constrained decoding.
  • Meta-generators (§4) are classified by program structure: chained, parallel (e.g., sampling many candidates and then voting or picking the best), step-level search, and refinement. §5 covers external information from multiple models, tools, and environments.
  • Efficiency is treated in two senses. §6 covers token budgets, cost–performance trade-offs, and compute-optimal inference, which matter when APIs charge per token. §7 covers systems-level speedups for generators and meta-generators and includes a review of libraries.
  • Practical recommendation: users of imperfect black-box APIs may benefit from treating the model as a hypothesis generator called many times inside a search procedure. The authors note that scaling behaviour differs across algorithms, for example in voting setups.
  • Publication: arXiv:2406.16838 (v2, November 2024), peer-reviewed via OpenReview for TMLR.
