START: Self-taught Reasoner with Tools
Paper · 2025 · Chengpeng Li, Mingfeng Xue, Zhenru Zhang et al.
Summary
Large Reasoning Models (LRMs) handle multi-step reasoning well but often make mistakes in exact arithmetic, enumeration and algorithmic steps. Off-the-shelf LRMs also tend to ignore instructions to call a code interpreter. START addresses this in two stages. First, Hint-infer is a training-free technique. It cuts the model's output where thinking ends, or at a "wait", and appends a short cue that nudges the model to write and run Python. This can be repeated, so more hints buy more test-time compute. Second, Hint-RFT builds training data. The authors define six hint categories and insert them after markers such as "Wait" and "Alternatively". They keep only traces where a hint turned a failed solution into a correct one, then scale the data with a second rejection fine-tuning round. Applied to QwQ-32B-Preview and DeepSeek-R1-Distill-Qwen-32B, the method improves competition math and GPQA, and it transfers partly to coding. It shows that tool use can be added to existing reasoning models without discarding their long chain-of-thought skills.
Key points
- Six hint types steer code use: complex calculations, self-reflection, logic check, alternative method, general and deeper thinking. Qwen-2.5-72B generated paraphrases of each hint to add variety.
- Training pipeline:
- A 10K-sample seed set, D_seed, was used to train START-0.
- START-0 then generated D_START, a 40K-sample set used to train the final model.
- The underlying 40K math problems came from past AIME, MATH and Numina-MATH, with decontamination applied.
- Headline results: AMC23 95.0%, AIME24 75.6% and GPQA 64.6%. Average math gains are 8.6 points for the QwQ-based model and 4.4 points for the R1-Distill-based model. QwQ-32B-Preview also gains 5.9% on LiveCodeBench.
- Ablation on the QwQ-based model: text-only RFT on the same data leaves the four-benchmark average unchanged at 65.2. START-Preview reaches 75.1, which points to tool use rather than data volume as the source of the gain. Keeping only hint-helped samples lifts START-0 from 67.6 to 69.0.
- At inference, sequences are capped at 32,768 tokens and the model may call the tool at most 6 times.
