A Survey of Efficient Reasoning for Large Reasoning Models: Language, Multimodality, and Beyond

Paper · 2025 · Xiaoye Qu, Yafu Li, Zhao-Chen Su et al.

Summary

Large Reasoning Models (LRMs) such as DeepSeek-R1, OpenAI o1/o3 and QwQ gain accuracy by writing long chain-of-thought (CoT) traces before answering. These traces are often bloated, which raises training and serving costs and hurts token-sensitive settings like agents. This survey, led from Shanghai AI Laboratory, maps the new literature on making such reasoning cheaper without losing quality. The authors define efficiency as expected solution quality divided by computational cost, averaged over a distribution of tasks. They then list typical failure modes: filler and repetition, excessive re-checking on easy questions, and shallow jumping between solution paths on hard ones. Methods are grouped by lifecycle stage:

  • inference-time controls, such as length budgets and switching between fast and slow modes;
  • SFT on compressed CoT;
  • RL with length-aware rewards or preferences;
  • pretraining choices, including linear-structure models and latent-space reasoning.

The paper ends with open problems in safety, reliability, tool-using agents and evaluation. It is a practical entry point for anyone deploying reasoning models under compute limits.

Key points

  • Motivating example: on a trivial question ("square of 3"), QwQ-32B spends about 1248 tokens, while Qwen2.5-32B-Instruct answers in 30. In a QwQ-32B trace for a simple word problem, 138 tokens go only to restating the question.
  • Efficiency metric: η(M) is the expectation over tasks T ∼ p(T) of Q(M, D)/C(M, D). Q is quality (e.g., accuracy, exact match) and C is cost (e.g., FLOPs, generated tokens, latency).
  • Taxonomy: methods are organized across Pre-training, SFT, RL and Inference. General acceleration such as quantization, pruning and distributed serving is explicitly out of scope.
  • Evaluation: efficiency is mostly measured on GSM8K, MATH, ASDIV and AIME. Other resources include outcome/process overthinking metrics (Chen et al., 2025e) and DNA Bench, which provokes over-reasoning.
  • Resource: a continuously updated paper list is kept at github.com/XiaoYee/Awesome_Efficient_LRM_Reasoning.
