RWKV-7 "Goose" with Expressive Dynamic State Evolution
Paper · 2025 · Bo Peng, Ruichong Zhang, Daniel Goldstein et al.
Summary
Transformers become expensive on long inputs because their key-value cache grows with sequence length. Recurrent alternatives keep a fixed-size state but have struggled to match Transformer quality and expressiveness. This paper introduces RWKV-7 "Goose", an RNN that uses constant memory and constant per-token inference cost and can still be trained in parallel. Its core is a generalized delta rule with three changes: channel-wise (vector) decay of the state, a per-channel in-context learning rate, and separate keys for erasing and writing state contents. These are built on top of RWKV-6 components. The authors prove the design can track state and recognize every regular language, which exceeds Transformers under the TC0 ≠ NC1 conjecture. They also assemble the 3.1-trillion-token multilingual RWKV World v3 corpus. Models were upgraded from earlier RWKV checkpoints rather than trained from scratch. The 2.9B model sets a multilingual record at the 3B scale and matches the best English results, despite seeing far fewer training tokens. Weights, code and the dataset component list are released under Apache 2.0.
Key points
- Released models:
- Four RWKV-7 World v3 models (0.19B–2.9B parameters), trained on 1.6–5.6T tokens.
- Three RWKV-7 Pile models (0.17B–1.47B) using the GPT-NeoX tokenizer, intended for architecture comparisons.
- Expressivity proofs: a single layer can solve the NC1-hard S5 state-tracking task, and a constant number of layers suffices to recognize any regular language.
- Training budget: at most 96 Nvidia H800 GPUs, using a method that upgrades older RWKV-5/RWKV-6 checkpoints instead of pre-training from scratch.
- Audio results: AudioRWKV-7 (19.8M parameters) reaches 0.431 mAP on AudioSet. This beats AudioRWKV-6 and approaches much larger CNN, Transformer and Mamba baselines.
- Limitations:
- The released models are base models only, with no SFT or RLHF.
- The WKV7 kernel is sensitive to numerical precision.
- Performance drops when the
<|endoftext|>token is missing from the prompt.
