VLSBench: Unveiling Visual Leakage in Multimodal Safety

Paper · 2025 · Xuhao Hu, Dongrui Liu, Hao Li et al.

Summary

Earlier work reported a puzzling result: aligning multimodal LLMs with text-only data seemed to make them about as safe as aligning them with image-text pairs. The authors explain this through Visual Safety Information Leakage (VSIL). In most multimodal safety benchmarks, the risky content shown in the image is also stated in the textual query, so a model can refuse based on the text alone. Such benchmarks therefore do not really test cross-modal safety understanding.

To fix this, they built VLSBench, which contains 2.2k image-text pairs. Its queries look harmless on their own, and the risk only appears when text and image are combined. The construction pipeline works as follows:

  • LLMs and MLLMs generate harmful queries, which are then detoxified.
  • Images come from existing datasets or are generated iteratively with Stable-Diffusion-3.5-Large.
  • Pairs are filtered by an MLLM and checked by humans.

Models from 2B to 78B, including GPT-4o, perform poorly on VLSBench. On this benchmark, multimodal alignment beats textual alignment. Overall, the work argues for evaluation and alignment methods that are genuinely cross-modal.

Key points

  • Measuring leakage: VSIL was quantified on SafeBench, JailbreakV-raw, Harmbench-mm and VLSafe, using LlamaGuard3-11B-Vision as the safety judge.
    • The gap between pairs judged harmful and pairs whose text alone is also harmful was below 1% on all four (0.27–0.91%).
  • Text-only alignment on leaky benchmarks: On these benchmarks, plain textual SFT reaches safety rates above 95%, comparable to MM-SFT, MM-DPO and MM-PPO, across LLaVA-v1.5-7B/13B and Qwen2-VL-7B.
  • Weak baseline safety on VLSBench: LLaVA-v1.5-7B scores only 6.6% safe.
    • A dedicated safety prompt raises this to 44.5%.
    • The same prompt lifts LLaVA-Mistral-7B from 11.19% to 56.8%.
  • Captions vs. images: Replacing images with textual captions generally improves safety, as tested on a 200-sample subset.
  • Images alone are not harmful: Two NSFW detectors flag 0.00% of VLSBench images, which confirms that the risk arises from the image-text combination.
    • Code and data are available at github.com/AI45Lab/VLSBench, with access restricted to authorized researchers.
