CoT-Valve: Length-Compressible Chain-of-Thought Tuning
Paper · 2025 · Xinyin Ma, Guangnian Wan, Runpeng Yu et al.
Summary
Reasoning models such as QwQ and DeepSeek-R1 produce long chains of thought even for trivial questions, which wastes tokens. Hard problems still benefit from extended reasoning. The authors propose CoT-Valve, which lets a single model produce reasoning of adjustable length rather than being fixed to one compressed style. They train a LoRA branch on long and short solutions that reach the same answer, so the LoRA update acts like a task vector for chain length. Scaling this update up or down at inference shortens or lengthens the output, and it even extrapolates to lengths not seen in training. Using this property, they build MixChain, a dataset with several chains of different lengths for each question. MixChain then supports two refinements: more precise length-controllable tuning and progressive compression. Experiments cover LLaMA models, QwQ-32B-Preview and distilled DeepSeek-R1 variants. CoT-Valve controls length better than prompting and outperforms earlier chain-compression baselines. This makes it practical to scale inference cost with task difficulty.
Key points
- On QwQ-32B-Preview, GSM8K chains shrink from 741 to 225 tokens while accuracy only slips from 95.07% to 94.92%. On AIME, chains drop from 6827 to 4629 tokens with just one extra wrong answer.
- Prompt-based length control is unreliable. Asking for under 20 tokens can still yield more than 350, whereas CoT-Valve reaches much shorter chains with better accuracy.
- Shorter is sometimes better on simple data. For LLaMA-3.2-1B-Instruct, CoT-Valve reaches 55.50 accuracy with 267 tokens, compared with 52.69 at 759.3 tokens when training on QwQ-generated long chains. Small models learn best from moderately short chains, not the shortest or longest ones.
- Progressive compression lifts short-CoT accuracy from 92.19 to 94.92 in an ablation. Fine-tuning on about 6k samples leaves MMLU, HellaSwag and PIQA scores intact.
- MixChain's shorter solutions earn higher step-level scores from Qwen2.5-Math-PRM-72B and Skywork-o1-Open-PRM-7B than the original long chains do.
