Code to Think, Think to Code: A Survey on Code-Enhanced Reasoning and Reasoning-Driven Code Intelligence in LLMs
Paper · 2025 · Dayu Yang, Tianyang Liu, Daoan Zhang et al.
Summary
This EMNLP 2025 survey, by authors from Meta AI, UC San Diego and the University of Rochester, examines the two-way relationship between programming ability and reasoning in large language models. It introduces no new dataset or model. Instead, it organizes existing work into a taxonomy with two branches.
The first branch covers how code supports reasoning. This includes adding code to pre-training or instruction tuning, and having models express solutions as executable programs whose outputs can be checked. The second branch traces how stronger reasoning has moved code intelligence beyond autocompletion. Examples include planning-based generation, reasoning about program behaviour, iterative self-debugging, and autonomous agents that resolve repository issues.
The authors compile reported results on GSM8K, SVAMP, MATH, HumanEval, MBPP and SWE-Bench Lite. These suggest that program-based and reasoning-driven methods usually outperform plain prompting. The survey closes with open problems: interpretability, data quality, long-form code generation, agent safety, multimodality and benchmark contamination. It is a practical map for anyone building code-aware or reasoning-focused systems.
Key points
- Taxonomy. Code-enhanced reasoning is split into training with code (MARIO, POET, CodePMP, SIAM) and code generation as a reasoning aid (PaL, PoT, MathCoder, CoC). Reasoning-enhanced code intelligence spans:
- basic code tasks (HumanEval, MBPP, RepoBench);
- reasoning for generation (SCoTs, Self-Planning, CodeCoT);
- reasoning over code (CRUXEval, RepoQA);
- interactive programming (Self-Edit, OpenCodeInterpreter);
- agents (SWE-agent, CodeAct, OpenHands, HyperAgent).
- Math reasoning results. On GSM8K, Codex rises from 19.7% with direct prompting to 72.0% with PAL. MathCoder-L (Llama-2-70B) reports 83.9%. The figures are best variants taken from different papers and models, so they are not strictly comparable.
- Code generation results. AgentCoder with GPT-4 reports 96.3 on HumanEval and 91.8 on MBPP. Codex scores 48.1 and 49.8 with direct prompting.
- Planning data. Wen et al. (2024a) built 2M prompt–response–code triplets for planning. Cited studies indicate that code in pre-training helps general reasoning, while code in instruction tuning mainly improves coding skills. The best mixing ratios appear to depend on the domain.
- Agentic reasoning models. Reasoning models such as o1 and DeepSeek-R1 show only limited gains on agent tasks. Reinforcement learning with execution feedback is highlighted as a promising direction.
