Survey of Hallucination in Natural Language Generation

Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2202.03629

Summary

Neural text generators built on Transformer models such as BART, GPT-2 and GPT-3 produce fluent output. They also often produce content that is unsupported by, or in conflict with, their input. This "hallucination" lowers quality and creates safety risks, for example in medical summaries, translated drug instructions, or leaked private data. Earlier reviews looked at single tasks such as summarization or translation. This survey from CAiRE (HKUST) is the first to cover the problem across natural language generation as a whole.

The survey has three parts:

  • General overview: terminology, causes, how hallucination is measured, how it is reduced, and open problems.
  • Task-specific analysis: abstractive summarization, dialogue, generative QA, data-to-text, NMT and vision-language generation.
  • LLMs: a section added in January 2024.

The authors sort hallucinations into two types, intrinsic and extrinsic, and argue that each needs different countermeasures. They trace the problem to both data and modeling. The work matters because it brings scattered research on faithfulness and factuality into one framework that researchers in all of these subfields can share.

Key points

  • Two types of hallucination: intrinsic output contradicts the source, while extrinsic output can be neither confirmed nor refuted by the source. Extrinsic content may still be factually correct, but it is usually treated as risky.
  • Causes: noisy training data, faulty parametric knowledge, flawed attention, unsuitable training strategies and exposure bias during inference.
  • Measurement and mitigation: metrics are grouped into statistical, model-based and human evaluation. Mitigation methods are grouped into data-related approaches and modeling/inference approaches.
  • Differences across tasks: errors are fairly easy to detect in summarization and NMT, where the source serves as evidence. Dialogue systems must balance diversity against consistency. Work on GQA and vision-language mitigation, which mostly targets object hallucination, is still early.
  • Open problems for LLMs: estimating what a model knows and expressing its uncertainty, reducing the "alignment tax" (e.g., ChatGPT/GPT-4 degrading after safety tuning, or RAG with weak evidence), and building a theory of hallucination (scaling, SFT vs. RLHF).
