Evaluating Object Hallucination in Large Vision-Language Models

Summary
Large vision-language models (LVLMs), which connect a powerful LLM to a visual encoder, often describe objects that are not actually in the image. This paper presents what the authors call the first systematic study of this object hallucination problem. They first apply the CHAIR metric to MSCOCO captions from five LVLMs: mPLUG-Owl, LLaVA, Multimodal-GPT, MiniGPT-4 and InstructBLIP. Most of these models hallucinate more than smaller vision-language pre-trained models. The errors trace back to the visual instruction data, since objects that are common or that often co-occur with objects in the image are the ones most frequently invented. CHAIR scores also shift with the prompt wording and caption length. To address this, the authors propose POPE (Polling-based Object Probing Evaluation), which turns evaluation into yes/no questions about whether a probed object is present. Negative objects are sampled randomly, by popularity or adversarially by co-occurrence. POPE gives more stable results and, paired with the SEEM segmentation tool, can be applied to unannotated images. This makes it a practical diagnostic of multimodal reliability.
Key points
- On CHAIR_S with the short-caption prompt, LLaVA scores 32.7 versus 13.0 for OSCAR Base. InstructBLIP hallucinates least among the LVLMs (3.7), which the authors credit to its short, diverse instructions drawn from public datasets.
- POPE has three sampling settings (random, popular, adversarial), and the popular and adversarial settings expose bias toward frequent and co-occurring objects.
- Consistency check: of the 1303 objects InstructBLIP answered "No" to, none appeared in its captions. For MiniGPT-4, only 5 of 1445 did, which supports POPE's validity.
- Lower hallucination does not guarantee better VQA. MiniGPT-4 beats LLaVA on POPE but trails it on A-OKVQA and GQA, and InstructBLIP leads on all of them (87.20 POPE on A-OKVQA).
- Stated limitations include evaluation on validation subsets only, yes/no detection by string matching, possible mismatch between SEEM labels and human annotations, and a small set of open-source models.
