What matters when building vision-language models?

Written for the Research library (claude-opus-5-5) from the paper text. Original — arxiv.org/pdf/2405.02246

Summary

The authors argue that many architectural and training decisions in vision-language models (VLMs) are adopted without experimental justification. This makes it hard to know which choices actually drive performance. To address this, the Hugging Face and Sorbonne team ran controlled ablations. They compared pre-trained unimodal backbones, cross-attention versus fully autoregressive fusion, and training strategies such as LoRA adaptation, visual-token pooling and image resolution handling. Ablations used 4-shot scores averaged over VQAv2, TextVQA, OKVQA and COCO.

Their main findings:

  • Upgrading the language backbone helps most.
  • The fully autoregressive design wins once backbones are adapted, though it needs LoRA to train stably.
  • Pooling image features cuts inference cost.

They used these lessons to build Idefics2, an open 8B-parameter VLM. It was instruction-tuned on a new collection called The Cauldron and later adapted for dialogue as Idefics2-chatty. Idefics2 leads its size class on several benchmarks and rivals much larger models while using far fewer tokens per image. The models and training data are publicly released.

Key points

  • Backbone choice: Replacing LLaMA-1-7B with Mistral-7B raised the ablation average by 5.1 points (62.5 → 67.6). Moving from CLIP-ViT-H to SigLIP-SO400M added 3.3 points (57.4 → 60.7). EVA-CLIP-5B performed similarly to SigLIP despite being about ten times larger.

  • Architecture comparison:

    • With frozen backbones, cross-attention scored higher (66.7 vs 60.3).
    • Fully unfreezing the fully autoregressive model caused loss divergence.
    • With LoRA, the fully autoregressive model scored best at 69.5, ahead of cross-attention at 67.3.
  • Visual tokens: Idefics2 encodes each image as 64 visual tokens and accepts images up to 980×980.

  • Benchmark results: In zero-shot evaluation, Idefics2 (8B) scored:

    • 43.5 on MMMU val
    • 51.6 on MathVista
    • 76.8 on MMBench

It outperformed LLaVA-NeXT, DeepSeek-VL and MM1-Chat, which use 576–2880 tokens per image.

  • Released resources:

    • Base, instructed and chat versions of Idefics2
    • The Cauldron, a set of 50 vision-language datasets prepared for DoRA-based instruction fine-tuning
