Summary
Open-source LLMs trailed closed systems such as GPT-4 on math benchmarks. Earlier fixes had drawbacks: continued pre-training on huge math corpora was costly, and fine-tuning on a single dataset (RFT, WizardMath) raised in-domain scores but often lowered accuracy on unseen math tasks. The authors built MathInstruct, a 260K-example instruction set drawn from 13 rationale datasets covering many math fields and difficulty levels. Six of these subsets got new GPT-4-generated rationales. The set mixes two solution styles: chain-of-thought (CoT), which reasons in natural language, and program-of-thought (PoT), which writes Python code that an interpreter runs. Generated programs were kept only when their executed output matched the gold answer. They fine-tuned Llama-2 and Code Llama at 7B–70B to get the MAmmoTH and MAmmoTH-Coder models. Across nine benchmarks, both in-domain and out-of-domain, these models beat earlier open models at every size, with average gains of roughly 16–32 points. The study shows that wide problem coverage combined with mixed CoT and PoT training generalizes better than tuning on narrow datasets.
Key points
- MathInstruct has about 260K (instruction, response) pairs in an Alpaca-style format. It draws on GSM8K, MATH, AQuA-RAT, TheoremQA, Camel-Math, MathQA, NumGLUE and others, and adds a new College-Math subset created with GPT-4 through Self-Instruct.
- The in-domain test sets are GSM8K, MATH, AQuA-RAT and NumGLUE. The out-of-domain sets are SVAMP, SAT, MMLU-Math, Mathematics and SimulEq.
- On the competition-level MATH benchmark, MAmmoTH-7B scores about 33%, far above WizardMath-7B at 10.7%. MAmmoTH-Coder-34B reaches about 44%, which beats GPT-4 when GPT-4 uses CoT prompting.
- Ablation with Llama-2-7B: the 9-dataset average is 32.0 with CoT-only data, 41.0 with PoT-only data and 47.9 with the hybrid data. At inference, the model tries PoT first and falls back to CoT when the program fails, which beats using either style alone.
- The authors trained and compared over 50 models. Settings were 3 epochs, batch size 128, learning rate 2e-5 for 7B/13B and 1e-5 for 34B/70B, with DeepSpeed ZeRO-3 for the largest models. Stated limitations: no training on proof problems, and weak coverage of areas like complex analysis and graph theory.
