Summary
This paper challenges the common belief that LLMs need hundreds of thousands of supervised examples to learn mathematical reasoning. The authors argue that modern foundation models already learn a lot of math during pre-training. If so, fine-tuning mainly has to show the model how to use that knowledge through long, careful reasoning. To test this, they built a very small dataset. They started from tens of millions of problems drawn from NuminaMath-CoT, DeepScaleR, past AIME papers, MATH and Chinese exam material. They removed problems that weaker models solve easily, kept hard and varied ones, and chose the clearest reasoning chain for each, leaving 800 examples. Plain SFT of Qwen2.5-32B-Instruct on this set produces LIMO. LIMO scores 63.3% on AIME24 and 95.6% on MATH500, and it also does well on out-of-distribution tests, beating models trained on roughly 100× more data. The authors state this as the LIMO Hypothesis: careful data selection and a knowledgeable base model matter more than data volume. Models, code and data are publicly released.
Key points
- Training data: the LIMO training set has just 800 curated question–solution pairs, about 1% of the data used by earlier SFT approaches. It is selected from a 2,125-question LIMO-pool by difficulty filtering (with Qwen2.5-Math-7B-Instruct and stronger models) and by scoring reasoning-chain quality.
- Comparison with a large-data baseline: fine-tuned on NuminaMath, the earlier models reach only 6.5% on AIME24 and 59.2% on MATH500, against LIMO's 63.3% and 95.6%. The authors also report a 45.8% absolute improvement across diverse benchmarks.
- Effect of pre-training: with the same 800 samples, Qwen1.5-32B-Chat reaches only 9.2% on AIME24, compared with 63.3% for Qwen2.5-32B-Instruct. This supports the claim that knowledge from pre-training is the key ingredient.
- Model size: across the Qwen2.5-Instruct sizes from 3B to 72B, AIME24 accuracy rises from 2.5 to 68.3. On MATH500, gains level off after 32B (95.6 for 32B vs. 94.8 for 72B).
- Amount of data: 400 samples already raise the base model from 16.5 to 57.5 on AIME24 and from 79.4 to 94.8 on MATH500. Returns shrink beyond 800 samples, and LIMO-2k peaks at 69.6 on AIME24 and 95.8 on MATH500.
