Summary
The paper looks at how large Transformer language models memorize their training data while they train, not only once training is finished, and how this changes as models grow. The authors define exact memorization as the share of training contexts where the model's top-ranked prediction matches the true next or masked token. In effect, this is accuracy on the training set. They train causal and masked models from 125M to 13B parameters on WIKITEXT-103 and the RoBERTa corpus, and vary model size, dataset size and learning rate. Bigger models reach a given memorization level after fewer passes over the data. They can also memorize more of it before overfitting begins, and they forget less. In controlled tests, a held-out batch is injected once and then tracked. Forgetting stops at a floor, which the authors call the forgetting baseline, and this floor rises with model size. Nouns and numbers are memorized first, which the authors explain as these tokens working like identifiers for single examples. The authors argue that memorization should be tracked alongside cross-entropy when scaling models, which matters for privacy and bias.
Key points
- Setup: Models of 125M, 355M, 1.3B, 2.7B, 6.7B and 13B parameters were trained with FairSeq/PyTorch, using FairScale fully sharded data parallelism for the larger ones. The datasets were WIKITEXT-103 (about 103M tokens) and the ROBERTA corpus (about 39B tokens).
- Speed of memorization: T(N, τ) is the number of times each training example must be seen to reach memorization level τ. At τ = 0.9 it falls steadily as model size grows, and the same trend broadly holds for τ from 0.4 to 0.95.
- Forgetting baseline: The baseline barely changes with the point where the special batch is injected (epochs 14, 39 or 63; differences around 10⁻³). Injecting the batch repeatedly raises it (around 10⁻²), while spaced repetition has little effect.
- Parts of speech: Nouns and numbers are memorized faster than other word classes. The authors support their "unique identifier" explanation with an experiment that adds an explicit identifier to each example.
- Memorization vs. loss: Exact memorization gives a lower bound for the k-eidetic and k-memorization measures used by Carlini et al. On the forgotten batch, perplexity keeps rising even after memorization levels off, so looking at cross-entropy alone would hide the forgetting baseline.
