Uni-OPD: Unifying On-Policy Distillation with a Dual-Perspective Recipe

Paper · 2026 · Wenjin Hou, Shangpin Peng, Weinong Wang et al.

Summary

On-policy distillation (OPD) trains a student on its own sampled outputs, with token-level feedback from teacher models. It is a popular way to merge several expert models into one, but it is unclear when it actually helps. The authors trace weak OPD results to two causes: the student rarely visits useful states during training, and the teacher's token-level signal can be unreliable on student rollouts. Their framework, Uni-OPD, works for both LLMs and MLLMs and tackles each cause separately. On the student side, it rebalances training data offline by difficulty and online by rollout correctness. On the teacher side, it adds an outcome-guided margin calibration. This step shifts token rewards so that correct trajectories always receive a higher summed score than incorrect ones. The method was tested on single-teacher, multi-teacher, strong-to-weak and cross-modal (text plus multimodal) setups. Uni-OPD beat standard OPD throughout and needed fewer optimization steps than RL. This makes it a practical recipe for combining specialist models into one reasoner.

Key points

  • The evaluation spans 5 ability domains and 16 benchmarks, covering both LLM and MLLM students.
  • The teacher pool includes LLM experts for math and code, plus MLLM experts for math, logic and document tasks. Merging extends from two teachers to three.
  • Margin calibration ("margin shift") applies a uniform per-token offset that restores the outcome ordering. In one example, a wrong rollout's distillation return drops from −0.17 to −0.39, while a correct one rises from −0.22 to 0.006.
  • A domain-specific RL teacher built on the same 4B backbone can still lift the student, sometimes above the teacher's own score. The authors conclude that the capability gap matters more than raw teacher strength.
  • Joint text and multimodal training improved both textual code generation and multimodal math/logic reasoning. Code is at github.com/WenjinHou/Uni-OPD.
