Self-Distilled RLVR

Paper · 2026 · Chenxu Yang, Chuanyu Qin, Qingyi Si et al.

Summary

Training reasoning LLMs with RLVR (for example, GRPO) assigns one sequence-level reward per rollout, so every token receives the same credit. On-policy self-distillation (OPSD) offers dense token-level supervision without a separate large teacher: the same model acts as teacher when given privileged information such as a reference answer. The authors show this setup is unstable. Accuracy climbs briefly and then falls, and the model increasingly refers to a reference solution it never sees at inference.

They trace the problem to information asymmetry. They prove that imitating a teacher conditioned on hidden data leaves an irreducible mutual-information gap, and the resulting gradient noise pushes the model to memorize input-to-answer shortcuts.

Their remedy, RLSD, keeps the verifier reward as the only source of update direction. It uses the teacher-to-student probability ratio solely to scale each token's update size. On Qwen3-VL-8B-Instruct, RLSD trains stably and achieves the highest mean accuracy over five benchmarks that test reasoning on multimodal inputs. The method matters because it provides cheap, fine-grained credit assignment without reward models or auxiliary networks.

Key points

  • OPSD failure mode: Validation accuracy peaks within roughly 10–20 training steps and then degrades. References to the hidden solution rise steadily over 100 steps, and teacher–student KL divergence stagnates rather than decreasing as it does under OPD.
  • Theory (Theorem 1): Distribution matching under privileged context contains a gap I(Y_t; R | X, Y_<t) > 0 that no student capacity can close. Per-sample gradients carry a deviation whose variance scales with this quantity.
  • Mechanism: RLSD is a drop-in replacement for GRPO's uniform advantage. It needs only one extra forward pass and no extra loss or model.
  • Results: RLSD beats the base model by 4.69% on average. RLSD at 200 steps already outperforms GRPO trained for 400 steps.
  • Scope: The current version evaluates only multimodal reasoning. The authors report preliminary gains on text and video tasks and on non-Qwen models.
