Reinforcement Learning via Self-Distillation

Paper · 2026 · Jonas Hubotter, Frederike Lubeck, Lejs Behric et al.

Summary

Policy-gradient RL with verifiable rewards, such as GRPO, gets only one scalar score per attempt. That makes it hard to tell which tokens caused a failure, and learning stops when every rollout in a group gets the same score. The authors point out that many environments also return text explaining the outcome, such as runtime errors, failed tests or judge comments. They call this setting Reinforcement Learning with Rich Feedback (RLRF).

Their method, Self-Distillation Policy Optimization (SDPO), uses the current model as its own teacher. It re-scores the answer it already sampled, this time with the feedback added to the prompt. A token-level KL loss then pulls the policy without feedback toward these hindsight predictions. SDPO needs no external teacher, reward model or extra sampling, and it fits into existing RLVR pipelines by replacing the advantage estimate. When only scalar rewards exist, successful rollouts act as feedback for the failed ones. SDPO beats a tuned GRPO baseline on scientific reasoning, tool use and LiveCodeBench v6, and its outputs are shorter. This gives a cheap source of dense, token-level credit for RL training of strong LLMs.

Key points

  • On LiveCodeBench v6 with Qwen3-8B, SDPO reaches 48.8% accuracy versus 41.2% for GRPO. It matches GRPO's final accuracy with about 4× fewer generations.
  • Without rich feedback (scientific reasoning and tool use, with Qwen3-8B and Olmo3-7B-Instruct), SDPO scores 70.2% versus 66.6% on aggregate. Its responses are up to 11× shorter.
  • Test-time self-distillation on very hard LiveCodeBench questions (base model pass@64 below 0.03) finds solutions as often as best-of-k sampling or multi-turn retries, using 3× fewer attempts.
  • The gains grow with model scale because the method depends on in-context learning ability. On weaker models SDPO can underperform GRPO, and it depends on the feedback being informative.
  • Computing the teacher's log-probs adds a small overhead. The code is released at github.com/lasgroup/SDPO.
