Chain of Hindsight Aligns Language Models with Feedback
Paper · 2023 · Hao Liu, Carmelo Sferrazza and Pieter Abbeel
Summary
Aligning large language models with human preferences usually relies on one of two approaches. Supervised finetuning (SFT) uses only positively rated outputs and therefore discards much of the available signal. RLHF uses all ratings but requires a learned reward model, which can be flawed, and a difficult reinforcement learning optimization. Liu, Sferrazza and Abbeel propose Chain of Hindsight (CoH), which keeps the plain next-token prediction objective used in pretraining but changes the training data. Several model responses to the same prompt are ranked by humans. The ranking is then expressed as templated natural-language feedback (for example, labelling one answer as worse and another as better), and the responses and feedback are combined into a single sequence. Loss is computed only on model-generated tokens, not on the feedback text. At inference, the model is prompted with positive feedback so that it produces the preferred kind of answer. On summarization and dialogue tasks, human raters preferred CoH over the pretrained model, several SFT variants and RLHF. This makes CoH a simple, scalable way to learn from both good and bad examples.
Key points
- Baselines: CoH is compared with the pretrained base model, SFT, SFT with unlikelihood loss (SFT-U), conditional SFT (C-SFT) and RLHF. It is also evaluated against Koala, a model supervised-finetuned on ShareGPT data.
- Preventing copying: Positive and negative examples in preference data such as the Anthropic helpful and harmless dataset are often very similar, so the model could simply copy the earlier example. To counter this, 0–5% of past tokens are randomly masked during training.
- Relation to prior work:
- HIR and Korbak et al.'s preference-conditioned pretraining are framed as special cases of CoH with a chain length of one.
- CoH extends conditional training from a single control token to a sequence of control tokens.
- Limitations:
- Chaining several outputs creates long sequences, which raises training compute.
- Evaluation depends on costly hired human labelers.
- Future directions: The authors suggest feedback from external environments such as unit tests, and online, iterative preference learning.
