CrossFit: A Few-shot Learning Challenge for Cross-task Generalization in NLP
Paper · 2021 · Qinyuan Ye, Bill Yuchen Lin and Xiang Ren
Summary
Pre-trained language models usually need large labeled datasets for each task. Existing few-shot techniques, such as prompt-based fine-tuning, still treat every target task in isolation. This paper asks whether a model can gain task-level (cross-task) generalization, so that experience with many earlier tasks lets it pick up a new task from only a handful of examples. The authors formalize this as the CrossFit challenge. It fixes how tasks are split into seen and unseen groups, what data is available during an upstream learning stage and a later few-shot fine-tuning stage, and how results are scored. To support it, they release the NLP Few-shot Gym: 160 few-shot tasks built from open datasets and converted to one text-to-text format. They add eight seen/unseen partitions and an aggregate metric, Average Relative Gain (ARG). Experiments mainly on BART-base show that upstream multi-task learning and meta-learning both improve few-shot results on unseen tasks, and simple multi-task training often wins. The choice of seen tasks strongly affects outcomes, which makes the benchmark a testbed for studying task similarity and transfer.
Key points
- The NLP Few-shot Gym covers 160 text-to-text tasks spanning classification, question answering, conditional generation and other types such as regression. Upstream tasks are kept few-shot: 16 examples per class for classification and 32 examples for other tasks.
- ARG averages the per-task relative change in score caused by upstream learning. This lets tasks scored with seven different metrics be compared on one scale: classification F1, accuracy, QA F1, EM, Rouge-L, Matthew and Pearson correlation.
- The compared methods were multi-task learning, MAML, first-order MAML and Reptile. Plain multi-task learning outperformed the meta-learning methods in many settings.
- Making upstream data 2–8× larger (Held-out-Para partition) gave inconsistent effects across tasks. Even 8× more data raised ARG by only about 4%.
- Gains from upstream learning persisted with 1024 training shots and generally grew with model size (BART-Large 406M, T5-v1.1-Base 248M vs. BART-base 139M). Combining upstream learning with PET hurt performance compared with direct fine-tuning. Code is available at github.com/INK-USC/CrossFit.
