Adapting Language Models for Zero-shot Learning by Meta-tuning on Dataset and Prompt Collections
Paper · 2021 · Ruiqi Zhong, Kristy Lee, Zheng Zhang et al.
Summary
Large pre-trained language models such as GPT-3 can classify text without labeled examples when given a suitable prompt. However, their next-word training goal does not directly match the task of answering such prompts. Zhong et al. close this gap with meta-tuning, which fine-tunes a model explicitly for zero-shot classification across many tasks. They recast 43 English classification datasets as binary Yes/No questions about an input context. The sources are Kaggle, HuggingFace, SemEval and published papers, and the tasks include sentiment, topic, stance and hate speech. The authors wrote 441 label descriptions by hand. To keep test tasks genuinely new, they tag each dataset with properties and never split datasets with identical tags between training and evaluation. Meta-tuned UnifiedQA beats both the original QA model and the earlier NLI-based state of the art, and larger models gain more. The authors argue that plain prompting probably understates what large LMs can do. They also argue that shared community work on collecting and standardizing datasets could push zero-shot learning further.
Key points
- Meta-dataset: 43 source datasets with 204 unique labels and 441 manually written question-style label descriptions (1–3 per label). Each description was checked by a second author. Noisy or overly hard sets, such as Multi-NLI, were used only for training.
- Model and metric: UnifiedQA (up to 770M parameters) was fine-tuned on the meta-dataset. It was scored by AUC-ROC of the "Yes" answer for each label description on held-out task groups.
- Scaling: Moving from 220M to 770M parameters raised AUC-ROC by 6.3%, which suggests even larger models would do better.
- Additional gains: Small improvements came from training on related datasets, ensembling several descriptions of the same label, and starting from a QA checkpoint. The approach also outperformed the NLI-based zero-shot system of Yin et al. (2019).
