Self-Distilled Reasoner: On-Policy Self-Distillation for Large Language Models

Paper · 2026 · Siyan Zhao, Zhihui Xie, Mengchen Liu et al.

Summary

Reasoning-oriented post-training of LLMs usually relies on RLVR (e.g., GRPO), SFT, or distillation from a stronger teacher, and each has a weakness. GRPO assigns one sparse reward to a whole sequence and gives no gradient when every sample in a group scores the same. SFT suffers from exposure bias. On-policy distillation needs a separate, usually larger teacher and ignores the reference solutions that datasets already contain. The authors propose On-Policy Self-Distillation (OPSD), in which a single model plays both roles. As the student, it sees only the problem and samples its own rollout. As the teacher, the same weights also receive the verified solution in the prompt and score each of the student's tokens. Training minimizes a token-level divergence between the two next-token distributions, and gradients flow only through the student's logits. On competition-level math benchmarks with Qwen3 models, OPSD beats SFT and off-policy distillation and matches or exceeds GRPO with much better token efficiency. The result shows that dense, on-policy supervision is possible without an external teacher.

Key points

  • The core assumption is that rationalizing a provided correct solution is easier than generating one, so a capable model can act as a privileged teacher for its own weaker, answer-blind version.
  • Three choices of divergence are supported: forward KL, reverse KL, and JSD. A per-token pointwise KL clipping mechanism keeps training stable, since stylistic tokens can otherwise overwhelm the signal from math tokens. On Qwen3-1.7B, clipping prevents degradation, and OPSD converges within roughly a hundred steps.
  • In an ablation on Qwen3-4B with 2048-token generations (pass@8), full-vocabulary logit distillation beats sampled-token distillation: 84.1 vs 82.1 on AIME25 and 60.0 vs 57.3 on HMMT25.
  • Further ablations cover student generation length (1024 vs 4096 tokens on Qwen3-1.7B) and student–teacher style mismatch.
  • Code is available at github.com/siyan-zhao/OPSD. Concurrent related work includes SDPO (environment feedback as privileged information) and SDFT (on-policy self-distillation for continual learning).
