Speculative Knowledge Distillation: Bridging the Teacher-Student Gap Through Interleaved Sampling
Paper · 2024 · Wenda Xu, Rujun Han, Zifeng Wang et al.
Summary
Distilling a large language model into a smaller one runs into two failure modes. Supervised KD trains on a fixed set of outputs, so it never sees the kind of text the student produces at inference time. On-policy KD trains on the student's own generations, but early on these are often poor and unfamiliar to the teacher, so the teacher's token-level feedback becomes unreliable.
The authors propose Speculative Knowledge Distillation (SKD), which borrows from speculative decoding. The student drafts each token. If that token is not among the teacher's top-K candidates, the teacher resamples it from its own distribution. The resulting mixed sequences are then used to minimize a token-level divergence between teacher and student. Early in training, many student tokens get replaced, so SKD resembles supervised KD. As the student improves, more of its tokens are kept and the method shifts toward on-policy KD.
SKD was tested on translation, summarization, math reasoning and instruction following, using Gemma and Qwen2 teacher–student pairs. It beat existing KD baselines across domains, data sizes and student initializations.
Key points
- Models: Teachers were supervised-fine-tuned Gemma-7B-it and Qwen-7B-it. Students were Gemma-2B and Qwen2-0.5B, in either instruction-tuned or SFT versions.
- Tasks: Assamese-to-English translation (measured with COMET), dialogue summarization (ROUGE-L) and GSM8K (accuracy).
- Gains for Gemma-7B → Gemma-2B, relative to supervised fine-tuning:
- about 41.8% on translation;
- 230% on summarization;
- 160% on arithmetic reasoning;
- after instruction-following training, 198% on held-out MATH and 360% on GSM plus.
- Baselines: Supervised FT, SeqKD, Supervised KD, On-policy KD and ImitKD. SKD reached the lowest validation KL after 350 training steps on all three tasks.
- Out-of-distribution analysis (perplexity on translation samples):
- Under the teacher, student-only samples scored 46.8, while SKD samples scored 10.8.
- Under the student, ground-truth outputs scored 5606.3, while SKD samples scored about 358.
- Code and data are published in the google-research GitHub repository under
speculative_kd.
